`python` and the portable `~/models/Qwen3.5-35B-A3B` path instead of the local
virtualenv and private filesystem path. Revise the NVFP4 mismatch statement to
report the R3 difference consistently with the support matrix in `qat.md`, or
align the status with that result.
Review comments at @tests/utils/test_vllm_mxfp4_restage_on_cpu.py:
- Around line 19-26: Update test collection in the module containing the
vllm_fp4_utils imports so it skips when vLLM is unavailable, before importing
verl.utils.vllm.vllm_fp4_utils. Alternatively, load vllm_fp4_utils.py directly
with importlib.util.spec_from_file_location, matching the approach used by the
other *_on_cpu tests.
Review comments at @verl/trainer/config/reward/reward.yaml:
- Around line 75-79: Update RolloutConfig.__post_init__ to normalize dict and
DictConfig quantization values into RolloutQuantizationConfig before downstream
use, preserving existing RolloutQuantizationConfig instances so server startup
can access quantization.enabled.
Review comments at @verl/utils/qat/compressed_tensors.py:
- Around line 576-579: Update the fallback in dispatch_rollout_weight_quantizer
so unsupported native quantization returns None when neither a rollout override
nor QAT is configured; retain the NotImplementedError when either feature
requires trainer-side export.
Review comments at @verl/utils/qat/modelopt.py:
- Around line 166-172: Update the running-scale logic around
`_nvfp4_global_scale` so the first observed `current` value initializes
`_verl_input_global_scale` directly; apply `torch.minimum` only when a previous
observation exists, preserving the running minimum thereafter.
Review comments at @verl/utils/vllm/vllm_quant_utils.py:
- Around line 228-229: Update apply_vllm_quant_patches to guard calls to
install_mxfp4_mxfp8_compressed_tensors_patch and
install_nvfp4_cutlass_compressed_tensors_patch against ImportError. Skip only
the unavailable installer and log a warning naming it and the import error, so
other quantization patches can proceed.
Review comments at @verl/workers/rollout/trtllm_rollout/trtllm_async_server.py:
- Around line 209-210: Update the NotImplementedError in the TRT-LLM
quantization check to state that quantization is unsupported by TRT-LLM and
direct users to the supported vLLM or SGLang rollout engines.

Preserve native quantization when no trainer-side export is requested.
ActorRolloutRefWorker.init_model calls dispatch_rollout_weight_quantizer for actor roles without a backend-specific guard. With the default rollout configuration and disabled QAT, the dispatcher reads the model's native quantization configuration. A GPT-OSS FSDP workflow saves a model with Mxfp4Config, so the dispatcher can raise for native quant_method="mxfp4" before actor initialization completes.
Return None when no rollout override and no QAT are configured. Keep the error when either feature explicitly requires trainer-side export.

Guard the optional FP4 patch installers.
apply_vllm_quant_patches runs for every model recognized as quantized, including native Fp8Config and compressed-tensors configurations. Each FP4 installer imports optional vLLM modules without handling ImportError. A vLLM build without those modules can therefore fail worker construction before an FP8 rollout starts.

### What does this PR do? Follow up #8287, add SGLang online weight refit for MXFP8, routed-expert MXFP4, and routed-expert NVFP4 rollouts. The trainer exports pre-quantized checkpoint tensors, while a bucket-aware SGLang custom loader stages canonical checkpoint layouts and rebuilds backend-specific kernel layouts after the final sync bucket without replacing CUDA-graph-captured storage. The implementation: - translates an all-MXFP8 compressed-tensors rollout configuration to SGLang's native `quant_method: mxfp8` schema and exports `weight_scale_inv`; - supports BF16 dense layers with MXFP4×MXFP8 or NVFP4 W4A4 routed experts; - stages MXFP8 scales and MXFP4/NVFP4 expert tensors across all weight-sync buckets, then reprocesses them once after the final bucket; - restores live storage if loading or post-processing fails; - pins validated FP8/MXFP8/MXFP4 SGLang paths to DeepGEMM while leaving NVFP4 backend selection to SGLang; - rejects the unsupported SGLang combination `linear=MXFP8, moe=MXFP4`; - rejects `delta_flush` for custom quantized refit because finalization requires the complete bucket sequence; - documents configuration, backend constraints, support status, and measured trainer–rollout mismatch. This PR overlaps with [#8130](#8130) on SGLang MXFP8 export and refit. The additional scope here is a unified refit lifecycle shared by MXFP8, MXFP4, and NVFP4, including FP4 checkpoint-layout staging, backend-specific in-place reconstruction, and Blackwell validation for all three formats. It also overlaps conceptually with [#7971](#7971), but that PR implements native NVFP4 training and vLLM rollout; this PR adds the SGLang NVFP4 refit path. AI assistance was used for implementation review, debugging, and preparation of this PR description. The final branch currently does not add committed unit tests; reviewers should treat the Blackwell measurements above as the available validation and require focused CPU coverage if needed. ### API and Usage Example All-MXFP8 rollout: ```yaml actor_rollout_ref: rollout: name: sglang quantization: linear: MXFP8 moe: MXFP8 ignore: - "re:.*linear_attn\\.in_proj_[ab]$" actor: megatron: qat: enable: true mode: mxfp8 ignore_patterns: - "*linear_attn.in_proj_a" - "*linear_attn.in_proj_b" ``` MXFP4 routed experts with BF16 dense layers: ```yaml actor_rollout_ref: rollout: name: sglang quantization: linear: null moe: MXFP4 actor: megatron: qat: enable: true mode: mxfp4 ``` NVFP4 routed experts with BF16 dense layers: ```yaml actor_rollout_ref: rollout: name: sglang quantization: linear: null moe: NVFP4 actor: megatron: qat: enable: true mode: nvfp4 ``` SGLang intentionally rejects `linear: MXFP8` together with `moe: MXFP4`. Use BF16 dense layers for SGLang MXFP4 rollout, or use vLLM for the mixed MXFP8-linear + MXFP4-MoE configuration. ### Design & Code Changes - `verl/utils/sglang/sglang_quant_utils.py` - resolves native and override quantization configurations; - translates all-MXFP8 compressed-tensors configurations to native SGLang MXFP8; - selects the required refit kind and registers one custom loader; - stages each bucket and sends a final marker to trigger post-load reconstruction; - fails fast for unsupported mixed MXFP8-linear + MXFP4-MoE rollout. - `verl/utils/sglang/sglang_fp8_utils.py` - rebuilds dense MXFP8 derived scale layouts; - stages canonical MoE scales and folds rebuilt layouts into captured storage. - `verl/utils/sglang/sglang_fp4_utils.py` - stages MXFP4 and NVFP4 expert checkpoint tensors; - publishes packed-weight aliases expected by SGLang loaders; - rebuilds backend layouts and preserves CUDA Graph storage. - `verl/utils/qat/compressed_tensors.py` - detects all-MXFP8 compressed-tensors configurations; - selects an SGLang-specific MXFP8 exporter that emits native scale names. - `verl/workers/rollout/sglang_rollout/async_sglang_server.py` - prepares the effective SGLang quantization configuration; - registers the refit loader and validated GEMM backends. - `verl/workers/rollout/sglang_rollout/sglang_rollout.py` - uses the custom loader for every bucket; - sends finalization after the last bucket; - rejects the incompatible `delta_flush` wire format. - `docs/low_precision/qat.md` - documents the support matrix, configuration, engine constraints, mismatch measurements, and limitations. ### Checklist Before Submitting - [x] Read the [Contribute Guide](https://github.com/verl-project/verl/blob/main/CONTRIBUTING.md). - [ ] Apply [pre-commit checks](https://github.com/verl-project/verl/blob/main/CONTRIBUTING.md#code-linting-and-formatting): `pre-commit install && pre-commit run --all-files --show-diff-on-failure --color=always`. - [x] Add / Update [the documentation](https://github.com/verl-project/verl/tree/main/docs). - [ ] Add unit or end-to-end test(s) to the CI workflow. Main moved low-precision rollout to trainer-side quantization (verl-project#8287): the trainer exports checkpoint-layout tensors and vLLM only loads them. Native NVFP4 now follows that boundary with a NVFP4_PER_TOKEN routed-expert preset: NVFP4 expert weights, quantized on the trainer with vLLM's scaled_fp4_quant, and activations quantized per token by FlashInfer's TRT-LLM kernel, matching Transformer Engine's row-scaled training. Refits keep vLLM's layerwise reload, so the in-place vLLM source patch is no longer needed. Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
…ut is quantized Since verl-project#8287, rollout.quantization is a RolloutQuantizationConfig with null fields when the rollout is off, so the trainer config always carries it. The sentinel armed itself on `quantization is not None` and was therefore on for every BF16 run, ready to blame quantization for any KL spike. It now uses the exporter's rule (dispatch_rollout_weight_quantizer): the rollout is quantized when rollout.quantization sets linear, moe or config_file, or when the model's own config.json carries a quantization_config (top level or under text_config). The driver reads that file only when actor_rollout_ref.model.path is a local directory. The label in the error message names what is active ("linear=MXFP8, moe=MXFP8", "native fp8"). A plain-string rollout.quantization (older configs) still arms it. Tests: default structured config off; linear only, moe only, config_file on; native quantization_config at both locations on; BF16, missing and remote model paths off. ### What does this PR do? Follow up [#8306](#8306) and [#8287](#8287), standardize supported vLLM FP8, MXFP8, and MXFP4 Linear/MoE rollout kernels on DeepGEMM. This aligns vLLM with the SGLang backend policy in #8306 and prepares for using the same kernels in training and inference, reducing differences in activation quantization, scale layouts, and fused-MoE epilogues. The implementation: - resolves the effective native or rollout-override quantization configuration before engine startup and requests `linear_backend=deep_gemm` and `moe_backend=deep_gemm` for non-NVFP4 low-precision rollouts; - routes compressed-tensors MXFP4 experts through vLLM's DeepGEMM FP4 backend with dynamic FP8 group-128 activations; - preserves bucketed in-place refit by replaying DeepGEMM post-processing into CUDA-graph-captured storage; - keeps NVFP4 on its validated FlashInfer CUTLASS W4A4 path because vLLM has no DeepGEMM NVFP4 backend; - allows `VERL_ROLLOUT_USE_DEEP_GEMM=0` to restore vLLM's automatic backend selection for CI or unsupported environments; - disables DeepGEMM E8M0 scale packing for Hopper FP8 block configurations with FP32 checkpoint scales, preserving the trainer-exported scale values; - documents the backend matrix, exceptions, and Blackwell mismatch measurements. vLLM 0.29 does not provide a DeepGEMM MXFP8 Linear kernel. verl still requests DeepGEMM consistently, but that one path falls back to vLLM's automatic selection (FlashInfer CuteDSL on Blackwell); MXFP8 MoE uses DeepGEMM. This is not a duplicate of [#7519](#7519), which focuses on MXFP8 training, consistency checks, and audits. It also differs from [#8293](#8293), which only keeps DeepSeek-V4 native MXFP4 `auto` backend selection refittable. This PR applies the backend policy to the unified low-precision vLLM rollout/refit path introduced by #8287. AI assistance was used to review the branch and prepare this PR description. Follow-ups to rebasing onto #8287, which moved rollout weight quantization to the trainer: - dispatch_rollout_weight_quantizer: honor a quantization_config set in rollout.engine_kwargs.vllm.hf_overrides (dict or JSON string) over the checkpoint's native one, as vLLM does. GLM-5.3-Flash's BF16 mode sets it to null; without this the trainer kept exporting FP8 weights plus weight_scale_inv into a BF16 rollout. - _resolve_mxfp4_quant_method: unwrap LoRA's FusedMoEModularMethod by its old_quant_method attribute and leave the Mxfp4MoEMethod type check to _is_mxfp4_fused_moe_module, so staging works on duck-typed methods (upstream's test_vllm_mxfp4_restage_on_cpu) and without vLLM installed. - DSv4-Flash / GLM-5.3-Flash LoRA scripts: drop the removed rollout.quantization=fp8; both checkpoints ship an FP8 quantization_config, which the rollout now uses as is. - Add CPU tests for the hf_overrides dispatch. ### What does this PR do? Adds the **MXFP8 training recipe** (`fp8_recipe: mxfp8`, Blackwell) to verl's Megatron path, an end-to-end example and its documentation, `docs/low_precision/mxfp8.md`. Together with what main already has, #8287 (the trainer quantizes the rollout weights with compressed-tensors) and #8306 (SGLang MXFP8 refit), this gives an MXFP8 RL recipe: MXFP8 GEMMs in training through Transformer Engine (TE), and an MXFP8 rollout on vLLM or SGLang. - **Training.** `fp8_recipe: mxfp8` already flows through `override_transformer_config`. The one functional gap was THD sequence padding: - TE's MXFP8 quantizer needs both GEMM dimensions divisible by 32, and the wgrad scale blocks run along the token dimension. - So packed sequences are padded to `lcm(32, align)` per sequence under MXFP8, using Megatron-Core's own `get_fp8_align_size` (the mapping it applies to its MoE FP8 padding). - Every other recipe keeps its previous alignment (`lcm(16, align)`). - **QAT combined with a TE FP8 recipe is rejected** at engine init: QAT fake-quantizes weights inside BF16 GEMMs, while an FP8 recipe switches the GEMMs themselves to FP8. - **Examples**, each with `PRECISION=mxfp8` (MXFP8 end to end) or `PRECISION=bf16` (the same job as the BF16 baseline): - `examples/mxfp8/run_qwen3_8b_megatron.sh`: GRPO on Qwen3-8B with GSM8K; the defaults fit one B200. - `examples/mxfp8/run_qwen3_30b_a3b_megatron.sh`: GRPO on Qwen3-30B-A3B (MoE) with DAPO-Math-17k on one 4×B200 node, experts included. - **Docs.** `docs/low_precision/mxfp8.md` (new, in the Low Precision toctree): the configuration, which kernels the vLLM and SGLang rollouts use, the examples with their results, and earlier runs on DAPO-Math-17k. Nothing changes unless an FP8 recipe is configured. This was part 1 of #7519's split; as the maintainers asked, it now stands alone (the consolidated #8314 was closed in favor of it). Making the THD packing helpers recipe-agnostic, as suggested in the review, follows in a separate PR. ### Checklist Before Starting - [x] Search for similar PRs: https://github.com/verl-project/verl/pulls?q=is%3Apr+mxfp8. …e VeOmni engine (#8369) ### What does this PR do? Since #8287 (unify QAT and low-precision rollout), `init_model` hands the actor engine a rollout weight quantizer whenever the rollout is quantized — for a checkpoint whose `quantization_config` is FP8 (e.g. DeepSeek-V4-Flash-Base), `dispatch_rollout_weight_quantizer` returns an `Fp8ConfigWeightQuantizer` — and calls `engine.set_rollout_weight_quantizer`, which only the Megatron engine implements. Every VeOmni-engine run on such a checkpoint, including `examples/grpo_trainer/run_deepseek_v4_veomni.sh` with its default model, therefore stops in `init_model`: ``` NotImplementedError: VeOmniEngineWithLMHead does not support trainer-side rollout quantization ``` This PR implements it the way the Megatron engine does: the engine keeps the quantizer and applies it to the per-tensor stream of `get_per_tensor_param`. For DeepSeek-V4, VeOmni's checkpoint converter already exports the release FP8/FP4 layout, and the quantizer is a pass-through for that model type (as for Megatron-Bridge's export); other models' BF16 streams get quantized to what the rollout loads. ### Checklist Before Starting - [x] Search for similar PRs: https://github.com/verl-project/verl/pulls?q=set_rollout_weight_quantizer - [x] Format the PR title as `[{modules}] {type}: {description}` ### Test - `tests/workers/test_veomni_rollout_quantizer_on_cpu.py`: the exported stream is returned unchanged without a quantizer and passes through it otherwise; the checkpoint's `hf_model` export stays unquantized, and `initialize()` hands the checkpoint manager that unquantized export. - `tests/utils/test_rollout_weight_quantizer_dispatch_on_cpu.py`: a `rollout.quantization` override for DeepSeek-V4 is rejected whether or not the checkpoint is quantized, and so is `delta_sharded` sync with a quantized rollout; DeepSeek-V4's native config still passes through, and an override for another model is dispatched. - End to end, with #8370 and #8371: `run_deepseek_v4_veomni.sh` with its defaults (DeepSeek-V4-Flash-Base, FP8) gets past `init_model` and trains on two nodes each of AMD gfx942 and gfx950. The trainer exports the FP8 weights through this path at every weight sync, and rollout and trainer token probabilities stay consistent after each sync. ### API and Usage Example No API or config change. `VeOmniEngine` now implements the existing `set_rollout_weight_quantizer` hook, so a run with `model_engine=veomni` on a checkpoint whose `quantization_config` is FP8 (such as `run_deepseek_v4_veomni.sh` with its default model) gets past `init_model`. Two combinations the trainer cannot sync now fail at `init_model` with an explicit error, for both engines: a `rollout.quantization` override for DeepSeek-V4, and `checkpoint_engine.backend='delta_sharded'` with a quantized rollout. ### Design & Code Changes - `VeOmniEngine.set_rollout_weight_quantizer` stores the quantizer; `get_per_tensor_param` applies it to the export of `_get_hf_export_per_tensor_param` (converter path and state-dict path). The checkpoint manager's `hf_model` export calls `_get_hf_export_per_tensor_param` directly, so saved checkpoints keep the trainer's weights. - `dispatch_rollout_weight_quantizer` rejects `rollout.quantization` overrides for DeepSeek-V4. Both engines export it under its checkpoint names (e.g. `ffn.experts`, which the override's `mlp.experts` MoE target does not match) and, for a quantized checkpoint, in its own FP8/FP4 layout, which `CompressedTensorsWeightQuantizer` passes through unchanged. - It also rejects `delta_sharded` sync for a quantized rollout: after the seed, that backend streams `get_per_tensor_param_delta_shard`, which bypasses the quantizer. vLLM's delta weight transfer already refuses quantized models; SGLang's delta loader has no such check. ### Checklist Before Submitting - [x] Read the Contribute Guide. - [x] Apply pre-commit checks. - [ ] Add / Update the documentation: not needed. - [x] Add unit or end-to-end test(s): `tests/workers/test_veomni_rollout_quantizer_on_cpu.py` and `tests/utils/test_rollout_weight_quantizer_dispatch_on_cpu.py` (CPU CI). - [ ] Once the PR is ready for CI, send a message in the `ci-request` channel of the verl Slack workspace. - [x] `recipe` submodule: not changed, so there is no submodule reference to update. --------- Co-authored-by: Cursor <cursoragent@cursor.com> Co-authored-by: wuxibin <wuxibin@bytedance.com>

…ized refit (#8483) ### What does this PR do? Quantized rollout (`rollout.quantization.linear/moe=FP8_BLOCK`) combined with an FP8 KV cache (`+actor_rollout_ref.rollout.engine_kwargs.vllm.kv_cache_dtype=fp8_e4m3`) makes vLLM generate garbage. This PR resets the attention q/k/v/prob scales to 1.0 after every quantized refit when the rollout quant config has no `kv_cache_scheme`. Each mode works alone; only the combination breaks. Root cause (checked in vLLM 0.29 and 0.32): 1. verl's compressed-tensors rollout config sets `kv_cache_scheme: None`, but vLLM still attaches a `CompressedTensorsKVCacheMethod` to every `Attention` layer. 2. Its `create_weights` registers `q/k/v_scale` placeholders initialized to 1.0. `load_format="dummy"` overwrites them with its seeded uniform values (all -7.5e-4 here). Unlike `KVCacheScaleParameter`, these placeholders set no `dummy_weight_value`. 3. `CompressedTensorsKVCacheMethod.process_weights_after_loading` adopts the loaded placeholders as the live `_q/_k/_v_scale` (and the `_float` copies). Unlike `BaseKVCacheMethod`, it has no "not in the checkpoint → 1.0" fallback. The dummy load also randomizes `_prob_scale`. 4. verl's refit sends no attention scales and re-processes only the linear/MoE layers, so the random scales are never corrected. With `kv_cache_dtype=fp8`, FA3 then quantizes Q/K/V with a scale of -7.5e-4. The fix adds `reset_uncalibrated_kv_cache_scales(model)` to `process_quanted_weights_after_loading`. For every layer whose quant method is a `BaseKVCacheMethod` and whose quant config has no `kv_cache_scheme`, it calls vLLM's own `set_default_quant_scales(layer, register_buffer=False)` under `torch.no_grad()`. The `no_grad` is needed because vLLM <= 0.29 keeps the scales as the grad-requiring placeholder Parameters. Configs that do carry a `kv_cache_scheme` are left untouched. With `kv_cache_dtype=auto` the scales are unused, so the reset is a no-op in effect. Not a duplicate: open PRs touching FP8 KV cache or KV scales were searched (queries below). #4435 adds an FP8 KV cache feature on the older FSDP path with per-step scale recalibration in `vllm_fp8_utils.py`; it does not touch the compressed-tensors refit path changed here (`vllm_quant_utils.py`, added by #8287). No open PR resets these scales. This PR does not add an FP8 KV cache option; it only stops the existing `engine_kwargs` passthrough from producing garbage with quantized rollout. AI assistance: this PR was prepared with AI assistance (Claude Code). I reproduced the bug, reviewed every changed line, and ran the tests below myself. ### Checklist Before Starting - [x] Search for similar PRs. It covers four cases: - scales stored as buffers (vLLM 0.32) and as grad-requiring Parameters (vLLM 0.29) are both reset; - a config with a `kv_cache_scheme` keeps its scales; - layers without a KV cache method are ignored; - `process_quanted_weights_after_loading` performs the reset. ``` pytest tests/utils/test_vllm_kv_cache_scale_reset_on_cpu.py # 5 passed; all 5 fail without the fix pytest tests/utils/test_vllm_*_on_cpu.py tests/workers/rollout/test_vllm_weight_update_utils_on_cpu.py # 56 passed pre-commit run --files verl/utils/vllm/vllm_quant_utils.py tests/utils/test_vllm_kv_cache_scale_reset_on_cpu.py # passed ``` **GPU repro on verl main + vLLM 0.32.0** (locked env, 1×H20, Qwen3-0.6B). Setup: dummy load with verl's `FP8_BLOCK` compressed-tensors config, then a refit of the real BF16 weights through `CompressedTensorsWeightQuantizer` → `prepare_quanted_weights_for_loading` → `model.load_weights` → `process_quanted_weights_after_loading`. Then greedy decoding of "The capital of France is": | KV cache | fix | layer-0 q/k/v/prob scale after refit | prompt log-probs | greedy output | |---|---|---|---|---| | auto (BF16) | – | 1.0 | -12.56, -0.50, -3.58, -0.37 | " Paris. The capital of France is also …" | | fp8_e4m3 | no | -7.46e-4 | -11.23, -21.75, -17.03, -27.64 | "-------\n-------\n-------\n…" | | fp8_e4m3 | yes | 1.0 | -12.85, -0.55, -3.87, -0.35 | " Paris. The capital of France is also …" | Before the fix, all 28/28 attention layers carry the dummy scales after a dummy load; after `process_quanted_weights_after_loading`, 0/28 do. **End-to-end** (earlier verl main with the same fix, vLLM 0.29). Setup: Qwen3-30B-A3B-Base, Megatron TE blockwise FP8 training + FP8_BLOCK rollout + `kv_cache_dtype=fp8_e4m3`, DAPO-Math, 8×H20. - Train-vs-rollout `k3_kl` probe (8 prompts × 4, 2K responses): NaN before the fix, 0.0066 after. For reference, BF16 gives 0.00085 and FP8_BLOCK without FP8 KV gives 0.0029. - AIME-2024 at step 0: 0.0 before the fix, 4.6% after (BF16: 5.4%). - The fixed run trained 100 steps stably; `k3_kl` over the last 20 steps was 0.0029. ### API and Usage Example No API or config change. FP8 KV cache with quantized rollout now works through the existing passthrough: ```bash actor_rollout_ref.rollout.quantization.linear=FP8_BLOCK \ actor_rollout_ref.rollout.quantization.moe=FP8_BLOCK \ +actor_rollout_ref.rollout.engine_kwargs.vllm.kv_cache_dtype=fp8_e4m3 ``` The KV cache then runs with q/k/v scales of 1.0 (uncalibrated), the same as an FP8 KV cache on an unquantized model. ### Design & Code Changes - `verl/utils/vllm/vllm_quant_utils.py`: new `reset_uncalibrated_kv_cache_scales(model)`, called from `process_quanted_weights_after_loading` (after the linear/MoE post-processing, before the ROCm `wo_a` cache rebuild). It returns early if the vLLM symbols are missing (older vLLM). - `tests/utils/test_vllm_kv_cache_scale_reset_on_cpu.py`: CPU unit test. Out of scope: - Calibrated KV scales: exporting per-layer `k_scale`/`v_scale` through a `kv_cache_scheme` on each refit. A user-provided `config_file` with a `kv_cache_scheme` keeps the dummy scales today, because verl does not export KV scales. This PR leaves that path unchanged. - SGLang: not checked. ### Checklist Before Submitting - [x] Read the [Contribute Guide](https://github.com/verl-project/verl/blob/main/CONTRIBUTING.md). - [x] Apply [pre-commit checks](https://github.com/verl-project/verl/blob/main/CONTRIBUTING.md#code-linting-and-formatting): `pre-commit install && pre-commit run --all-files --show-diff-on-failure --color=always` - [ ] Add / Update [the documentation](https://github.com/verl-project/verl/tree/main/docs). …h live refit (#7971) ### What does this PR do? Add end-to-end native NVFP4 W4A4 training and rollout on NVIDIA Blackwell GPUs, demonstrated with Qwen3-30B-A3B-Base DAPO using Megatron/Transformer Engine and vLLM. This contributes to Sophia's [low-precision roadmap #5972](#5972), specifically **NVFP4 real quant** and **NVFP4 training in Megatron**. In brief: - **Training:** Transformer Engine runs selected routed-expert MLPs in NVFP4 with per-token activation scaling and dequantized backward. Persistent policy weights remain BF16, with full optimizer state. - **Weight synchronization:** following the trainer-side quantization boundary of #8287, the trainer exports the routed experts as NVFP4 with `moe: NVFP4` and `moe_activation: nvfp4_per_token` after each policy update. - **Rollout:** vLLM loads the NVFP4 expert weights and quantizes activations per token, matching training. Refit preserves the storage referenced by CUDA graphs. Attention and the configured boundary-layer MLPs remain BF16. The Qwen3 example keeps the first two and last four MLP layers in BF16 and applies NVFP4 to the remaining 42 routed-expert MLP layers. ### Checklist Before Starting - [x] Search for similar PRs: [NVFP4](https://github.com/verl-project/verl/pulls?q=is%3Apr+is%3Aopen+NVFP4), [roadmap #5972](https://github.com/verl-project/verl/pulls?q=is%3Apr+is%3Aopen+5972+in%3Abody). - [x] Format the PR title as `[{modules}] {type}: {description}`. The trainer-side export is bit-identical to vLLM's online `nvfp4_per_token` quantization, and 6-step runs on Qwen3-30B-A3B (8 × 4 GB200) and a small DeepSeek-V3-layout model pass. #### Long run BF16 and W4A4 runs of the example script below (Qwen3-30B-A3B-Base, DAPO, R3, token-level TIS) on 8 nodes × 4 GB200 GPUs, 700 steps with checkpoint resume across jobs. **W4A4 vs BF16:** **Training score (`critic/score/mean`)** <img width="1813" height="957" alt="image" src="https://github.com/user-attachments/assets/d0693c0b-6789-4285-8658-44a885d72a72" /> **Entropy (`actor/entropy`)** <img width="1814" height="952" alt="image" src="https://github.com/user-attachments/assets/e63b552c-fe9b-4b23-9751-62c38976732c" /> **Train–rollout mismatch (`rollout_corr/kl`)** <img width="1811" height="952" alt="image" src="https://github.com/user-attachments/assets/13131fe5-c670-41ea-91e1-68e5fff123ee" /> **Gradient norm (`actor/grad_norm`)** <img width="1813" height="953" alt="image" src="https://github.com/user-attachments/assets/b121c562-b6f7-4432-8a7e-ed5768d78e69" /> **Performance:** at matched response length, NVFP4 rollout generation is about 1.3× faster than BF16 once the mean response exceeds ~2.5k tokens, giving roughly 1.2× shorter end-to-end steps; NVFP4 training itself is still slower than BF16 in Transformer Engine. ### API and Usage Example With a Ray cluster running on eight nodes, provide model and dataset paths shared by all workers: ```bash MODEL_PATH=/shared/models/Qwen3-30B-A3B-Base \ TRAIN_FILE=/shared/data/train.parquet \ TEST_FILE=/shared/data/validation.parquet \ EXP_NAME=qwen3-native-nvfp4 \ PRECISION_MODE=real_nvfp4 \ bash examples/real_nvfp4/run_qwen3_30b_megatron.sh ``` Use `PRECISION_MODE=bf16` for the baseline. NVFP4 training is enabled like FP8 training, through `actor_rollout_ref.actor.megatron.override_transformer_config` (`fp4: e2m1`, `fp4_recipe: nvfp4`, and `first_last_layers_bf16` with `num_layers_at_start_in_bf16` / `num_layers_at_end_in_bf16`), and rollout through `actor_rollout_ref.rollout.quantization.moe=NVFP4` with `moe_activation=nvfp4_per_token`, whose `ignore` list keeps the same layers in BF16; the trainer checks that the two agree. The example uses the standard verl PPO entry point, parquet datasets and built-in reward manager, with the DAPO recipe (clip-higher, token-level loss, dynamic sampling and the overlong penalty), R3 routing replay and token-level TIS. See [the example guide](https://github.com/zhangyimi/verl/blob/feat/native-nvfp4/examples/real_nvfp4/README.md) for configuration and runtime setup. ### Design & Code Changes - **Training precision:** the Megatron per-module recipe (attention BF16, routed-expert MLPs NVFP4, carved-out layers BF16) is generated from the configuration rather than maintained as a file. After model construction, the effective precision of every attention and expert linear layer is checked against it. Packed THD sequences use the TE alignment for FP4 as for FP8. - **Rollout config and refit:** `moe_activation=nvfp4_per_token` selects a compressed-tensors scheme (NVFP4 weights, fully dynamic NVFP4 inputs). The trainer quantizes the experts with its own Triton kernel, sharing one global scale across `gate_proj`/`up_proj`, bit-identical to vLLM's online `nvfp4_per_token` quantization. In vLLM the scheme selects FlashInfer TRT-LLM with per-token activations; refits load each bucket in place into the expert storage captured by CUDA graphs and post-process each MoE layer, so the extra memory is one MoE layer. - **Routing replay:** use vLLM’s native fused-MoE routing capture and align replay data with FP4 training padding. - **Runtime compatibility:** Transformer Engine 2.20.2 from the verl wheelhouse. No vLLM source patch is needed. The validated Megatron + vLLM stack uses: | Component | Version | |---|---| | PyTorch | 2.13 / CUDA 13 | | vLLM | 0.32.0 | | Transformers | 5.16.1 | | Megatron-Core | 0.19.2 | | Megatron-Bridge | 0.6.2 | | Transformer Engine | 2.20.2 | | FlashInfer | 0.7.0.post1 | | CUTLASS DSL / QuACK | 4.8.0 / 0.6.5 | SGLang end-to-end validation remains follow-up work. ### Checklist Before Submitting - [x] Read the [Contribute Guide](https://github.com/verl-project/verl/blob/main/CONTRIBUTING.md). - [ ] Run the complete all-files pre-commit suite. …8494) ### What does this PR do? NVFP4 QAT now uses per-token activations, the same scheme as the NVFP4 rollout from #7971. The static per-tensor activation scale is removed. Why per-token: - Each token is quantized with a scale from its own amax, independent of the other tokens in the batch and of earlier training steps. The static scale was a running max of the observed amax, so tokens much smaller than the largest activation seen so far lost block-scale range, and it was 1.0 until the first training step. - Much lower training-inference mismatch in RL training: mean `rollout_corr/k3_kl` over 100 steps 0.060 → 0.0033, the same as native NVFP4 training (see Test). Changes: - `rollout.quantization.moe: NVFP4` always uses per-token activations; `moe_activation` now defaults to `nvfp4_per_token`. - Fake quantization matches FlashInfer's per-token activation quantization and the trainer-side weight export bitwise. - **Breaking:** removes the static NVFP4 refit for SGLang. verl does not support per-token NVFP4 with SGLang yet. - **Breaking:** removes FSDP QAT (`QATLinear`, `QATQuantizer`, `actor.qat` and the FSDP engine's `qat` config). It has been unreachable since #8287: its `w4a16`/`w4a4` modes match no rollout preset, and the FSDP engine has no trainer-side rollout quantizer. QAT requires the Megatron engine. - Merges `nvfp4_qat.md` into `qat.md`. ### Test RL training, Qwen3-30B-A3B-Base on DAPO-Math-17k, 8x4 GB200, 100 steps. What does this PR do?
This PR refactors Megatron QAT and low-precision rollout around a unified trainer-side weight quantization and rollout-side refit boundary.
fp8,mxfp8,mxfp4,mxfp4_mxfp8, andnvfp4.rollout.quantization=fp8API with structuredrollout.quantization.linear,moe,ignore, andconfig_filesettings.verl.utils.modeloptimplementation and TRT-LLM rollout quantization support.Related to #5972 and #4066.
This PR has partial scope overlap with open low-precision work, but uses a materially different architecture: #7519 implements Transformer Engine shared-grid MXFP8 training and rollout, while this PR implements ModelOpt QAT plus a generalized trainer-side compressed-tensors export boundary for multiple formats; #7971 implements native Transformer Engine NVFP4 real quantization, while this PR implements NVFP4 fake-quant QAT and pre-quantized refit; #8205 fixes the legacy FSDP NVFP4 compressor API, while this PR refactors the Megatron and rollout path and does not add this feature to FSDP.
AI assistance was used to review the branch, fix two review findings, add a regression test, and prepare this PR description. The human submitter reviewed the changes and is responsible for the contribution end to end.
