Summary

This PR introduces an MoE megakernel backend and integrates Mixture-of-Kittens (MOK) as the first backend.

MOK replaces the post-router MoE execution path, including dispatch, routed and shared expert computation, and combine.

The MOK implementation used by this PR is maintained on the following integration
branch:

https://github.com/QiZhangNV/mixture-of-kittens/tree/qizhang/mcore-integration

Design

Pluggable megakernel backend

A generic MegakernelBackend boundary is added so that future megakernel
implementations can be selected through:

moe_megakernel_backend: mok

MOK-specific implementation details are isolated under the MOK backend directory
instead of being added directly to the normal MCore MoE execution path.

MCore-owned parameters

MCore remains the canonical owner of routed and shared expert parameters.

The adapter exposes MCore/Transformer Engine storage to MOK through tensor views or descriptor tables without registering duplicate optimizer parameters.

Both routed-weight layouts are supported:

  • moe_single_grouped_weight=True
  • Per-expert non-single weights

For MXFP8 weights, the adapter builds MOK-compatible data and scale views over the native TE-managed storage. Converted scale layouts are refreshed once per optimizer iteration while retaining CUDA-Graph-stable addresses.

Authoritative routing maps

MOK consumes the routing map produced by the MCore router. A Triton adapter converts the dense routing map into MOK's fixed-width routing representation and gathers the corresponding router probabilities. Missing routes are represented by expert ID -1, allowing the backend to preserve routing decisions when a token has fewer than top-k valid routes.

The backward adapter scatters router-weight gradients back into the original dense probability tensor.

Gradient accumulation

MOK writes routed and shared expert gradients into MCore-owned main_grad buffers. Both single-grouped and per-expert non-single storage are supported.

This initial integration requires:

gradient_accumulation_fusion: true

Non-fused gradient accumulation is intentionally rejected and left as follow-up work.

Checkpointing

The checkpoint remains expressed through the native MCore modules and parameter names. MOK parameter aliases do not introduce additional checkpoint ownership.

Distributed checkpoint save/resume has been validated for the supported single-weight and non-single-weight configurations.

Checkpoint conversion between different physical weight layouts is not included in this PR.

Supported configurations

The current integration has been validated with:

  • GB300
  • BF16 routed experts
  • MXFP8 routed experts
  • Single-grouped and per-expert non-single routed weights
  • BF16 shared experts
  • Fused gradient accumulation
  • FP8 parameter gather and gradient-buffer reuse
  • Full-iteration CUDA Graph
  • MoE layer recompute
  • Force-balanced and non-force-balanced routing
  • Distributed checkpoint save and resume

Current MOK limitations include:

  • Routed and shared experts must use the same intermediate size
  • Shared expert parameters must remain BF16
  • MCore's optional shared-expert output gate is not supported
  • Non-fused gradient accumulation is not supported

Validation

Proxy model

The integration was validated on a 32×GB300 Proxy configuration with:

  • TP1 / PP2 / EP16
  • Sequence length 4096
  • 96 routed experts
  • BF16 and MXFP8
  • Single-grouped and non-single weights
  • Continuous training and distributed-checkpoint save/resume
  • Full-iteration CUDA Graph and eager execution

All tested cases completed without skipped or NaN iterations. The refactored single/non-single paths retained the previously validated loss behavior and performance.

For the current MXFP8 non-single Proxy runs:

Implementation Median TFLOPS/GPU Iter-50 loss
MCore FusedMLP baseline 939.3 1.074571
MOK 988.2 1.051451

These jobs used separate allocations, so the result should be treated as an E2E performance indication rather than a controlled kernel-only comparison.

DSv4-Pro Full Model

The formal Full Model experiment used:

  • 256×GB300
  • 61 layers
  • 384 routed experts, top-k 6
  • TP1 / PP4 / EP64 / VPP4
  • Sequence length 4096
  • MBS1 / GBS4096
  • MXFP8 routed experts with BF16 main gradients
  • Non-single routed weights
  • Full-iteration CUDA Graph
  • Selective recompute and activation offload
Implementation Median latency Median TFLOPS/GPU Iter-50 loss PP0 total device memory
MCore HybridEP + FusedMLP 22.376 s 944.75 0.2207791 281,381 MB
MOK non-single 20.857 s 1013.50 0.2167743 268,027 MB

This corresponds to a 1.0728× median latency speedup and approximately 13.4 GB less PP0 physical device memory. The jobs used separate allocations.

A later post-refactor regression run achieved 1068.1 median TFLOPS/GPU.

Test plan

  • MOK unit and operator tests
  • BF16 single-grouped Proxy training
  • BF16 non-single Proxy training
  • MXFP8 single-grouped Proxy training
  • MXFP8 non-single Proxy training
  • Force-balanced routing
  • Non-force-balanced routing with missing route slots
  • Distributed checkpoint save and resume
  • Full-iteration CUDA Graph
  • MoE layer recompute
  • 50-iteration 256-GPU DSv4-Pro Full Model training
  • Pre/post-refactor loss, throughput, and memory comparison

Possible feature work

  • Batch the per-expert MXFP8 scale swizzle to reduce weight-preparation overhead.
  • Let megakernels consume MCore routing results directly to remove the standalone conversion.
  • Add support for additional shared-expert configurations and precisions.
  • Support non-fused gradient accumulation and zero_out_wgrad if required.

Add a CUDA-graph-compatible Triton autograd path that compacts dense routing maps into fixed-width MOK weights and int32 expert IDs, using -1 padding for missing routes. Switch the MOK adapter away from recomputing torch.topk and cover output and router-gradient correctness.

Comment thread megatron/core/transformer/transformer_config.py Outdated
Keep native routed and shared expert modules as the canonical parameter, optimizer, DDP, and checkpoint owners. MOK now aliases those parameters without copying payloads, omits the aliases from regular and distributed state dicts, ignores legacy alias keys on load, and invalidates derived runtime caches. Add coverage for single/non-single layouts and combined shared-weight gradients.

Introduce a backend-neutral MoE megakernel boundary, split the MOK adapter into routing, runtime, weight, and gradient modules, and derive routed precision from native MCore configuration.

Construct MOK shared experts as native BF16 parameters while preserving MCore parameter, DDP, optimizer, and checkpoint ownership. Remove the experimental lifecycle, initialization, and unrelated local workaround code.

Signed-off-by: qizhang <qizhang@nvidia.com>
Keep ordinary shared-expert construction on the original MCore path instead of passing it through megakernel hooks.

Reject whole-MoE activation recomputation for MOK explicitly until checkpoint replay with symmetric-memory scheduling and fused main-gradient accumulation is validated.

…8 DSA indexer (DSv4 flash, 2026-09-12)

On top of handoff/chunkgraph-pool-0910 (2e20861). Validated on 2 x 8 GPU proxies (PP2xEP4, CP4, CP8) and 128x GB200
(jobs 7105331 MOK+graph, 7105856 MOK eager, 7106321 native+graph). NOT a mergeable PR (env-gated experiment switches).
See HANDOFF_chunkgraph_pool_mok_5992_0912.md for the flags/env of the best configuration, measurements and known issues.

Functional changes:
- MOK megakernel backend (upstream NVIDIA#6572 ported) + MCORE_MOK_ALLOW_CHUNK_GRAPH=1 to run MOK inside chunk-granularity CUDA graphs
- cuda_graphs.py: clone_param_grads_on_return=False under gradient_accumulation_fusion (MOK's param.detach() sentinel grads
broke TE's post-replay weak-ref clone with MXFP8 params: CUDA error invalid argument); MCORE_CG_CLONE_PARAM_GRADS=1 restores
- compact BF16/MXFP8 DSA indexer (upstream NVIDIA#5992 ported; --dsa-indexer-precision, capture-time compact workspace lookup)
- recompute_window.py: current CUDA device set at checkpoint-window entry (cuTile kernels in recompute on the autograd thread)
- training.py: dataset sizing under --step-batch-size-schedule
- pretrain_hybrid.py: env-gated SIGUSR1 all-thread stack dump for hang localisation
- linear CE Blackwell kernels: cute.make_fragment -> make_rmem_tensor alias for newer CUTLASS DSL (untested)

* revert: drop the early multimodal_dev test/CI cherry-picks superseded upstream

Upstream NVIDIA#6083 (a1fa3e5, "ci: guard examples/multimodal_dev with a
unit-test bucket") is the final, reviewed version of four early commits
carried on dev_mdp by the same author. Keeping both would leave an early
and a final version of the same work in one tree.

Reverted:
816ccf3 Fix mRoPE parity test stub missing new config fields
  62e10ca test(examples/multimodal_dev): repair stale rope_utils config stub
0194190 test(examples/multimodal_dev): make the standalone harnesses pytest tests
e0df736 ci: run the examples/multimodal_dev suite as a unit-test bucket

Evidence that upstream fully absorbed them: test_thd_correctness.py is
byte-identical between dev_mdp and origin/dev, and the upstream conftest.py
is a strict superset (+57 lines) of ours, additionally carrying a cleanup
hook for the NCCL process group and restricting the exit-code-5 remap to
the --experimental pass.

The upstream versions arrive with the subsequent merge of origin/dev.

Signed-off-by: Li Tao <lit@nvidia.com>

* revert: drop the early multimodal_dev PP support superseded by upstream NVIDIA#6081

Upstream c82b949 ("[Dev] Add pipeline-parallel support to multimodal
training in multimodal_dev code path (NVIDIA#6081)", 2026-09-18) is the final,
reviewed version of dev_mdp's 3f29946, by the same author. It landed
upstream after the sync research was written, which is why PR_MAPPING.md
still records 3f29946 as having no upstream counterpart.

Upstream's version is both larger and already expressed on top of the
NVIDIA#6315 HybridModel refactor: test_pp_support.py 553 lines vs our 401, plus
a new test_run_script_fsdp_pp.py, conftest hooks and a data/mock.py fix.
Carrying ours as well would leave two PP implementations in one tree.

Two hunks could not be reverted mechanically, because later MDP commits
build on them; both are resolved to keep the MDP work and drop only the
PP-specific parts:

- models/base.py: the MDP stack refactored the reverted region into
_prepare_decoder_inputs(). Ours is kept as-is here and reconciled
against upstream in the merge commit instead.
- models/qwen35_vl/model.py: build_vision_encoder (MDP's replicated
encoder domain) is kept; pre_process/post_process/vp_stage are dropped.

The PP>1 rejection in pretrain_multimodal.py is restored by this revert
and removed again by the merge, where upstream's PP support arrives.

Signed-off-by: Li Tao <lit@nvidia.com>

* fix(multimodal_dev): bind emit_pixels ahead of the THD/BSHD split

The merge unified the two independent reasons to skip pixel materialization
-- upstream's non-first pipeline stage (include_pixel_values) and MDP's
owner-sharded capture window (suppress_pixels) -- into a single emit_pixels
predicate, but computed it inside the packed/THD branch of
pack_or_pad_batch() while also consulting it from the BSHD branch.

Any BSHD collation therefore raised

UnboundLocalError: cannot access local variable 'emit_pixels'
where it is not associated with a value

caught by examples/multimodal_dev/tests/test_thd_e2e.py::
TestPackOrPadBatchPadded::test_equal_lengths.

Hoist both bindings above the layout split; both layouts consult them and
neither depends on packing.

* fix(mdp): give MockSFTLowLevelDataset a vocab_size for length-only draws

Upstream now rejects MockSFTLowLevelDataset in "file"/"distribution" mode
unless vocab_size >= 2, because that class can also synthesize token ids:

ValueError: Generated mock data requires vocab_size >= 2. If
tokenizer.vocab_size is unavailable, set vocab_size in the mock dataset
    config JSON; got None.

MDP builds it for one purpose only -- to read `.sequence_lengths` and draw
per-sample total token lengths -- and never materializes a token, so it had
no reason to supply a vocabulary and did not.

Supply a nominal vocab_size when the caller's --mdp-mock-dataset-config-json
payload does not already carry one. vocab_size is not an input to
generate_lognormal_samples(), so the drawn lengths, and therefore the
scenario pool and every rank's view of it, are bit-identical to before.

Without this the whole mdp_mock data path -- not just the tests -- fails at
startup after the merge. Caught by
examples/multimodal_dev/tests/test_thd_static_packing.py::
TestMockLengthDistribution (5 tests).

* fix(mdp): drive the MDP proxy runner from --hybrid-layer-pattern

Since the Qwen3.5-VL HybridModel migration, the model factory rejects a run
that does not pass --hybrid-layer-pattern:

ValueError: Qwen3.5-VL uses HybridModel and requires
--hybrid-layer-pattern. Use GEGEGE*E per four MoE blocks (or G-G-G-*-
for dense blocks), and append /*E or /*- for each MTP depth.

run_mdp_experiments.sh is fork-only, so upstream could not update it; it
still described the GDN placement with --linear-attention-freq 4, which
HybridModel ignores. Every MDP proxy run therefore failed at startup after
the merge.

Port the expansion upstream added to run_qwen35_vl.sh: ATTN_CADENCE is one
period of the attention layout ('G' GatedDeltaNet, '*' full attention),
repeated and truncated to NUM_LAYERS, each block followed by its MLP symbol
('E' MoE / '-' dense), then one "/<last-attn><mlp>" per MTP depth.

The default cadence "GGG*" is exactly what --linear-attention-freq 4
expressed, so the model is unchanged: the study shape (NUM_LAYERS=8,
NUM_EXPERTS=8, MTP_NUM_LAYERS=1) yields GEGEGE*EGEGEGE*E/*E. GDN=0
degenerates to all-full-attention. --linear-attention-freq is dropped rather
than kept alongside, since TransformerConfig skips its assertion for hybrid
models and keeping it would create a second source of truth.

* fix(mdp): pass --position-embedding-type mrope and --mrope-section in the proxy runner

The Qwen3.5-VL factory now validates both explicitly:

    ValueError: Qwen3.5-VL requires --mrope-section 11 11 10, but got None.
The section split is tied to kv_channels and ROTARY_PERCENT; a mismatch
silently misplaces the T/H/W channel boundaries.

Before the HybridModel migration, MultimodalModel hard-coded
position_embedding_type="mrope" when constructing the decoder, so the proxy
runner could pass --position-embedding-type rope and still get an MRoPE
model. The migrated model threads the CLI value through and rejects anything
but mrope, and takes the section split from --mrope-section rather than an
internal constant.

Pass both. 11 11 10 matches MROPE_SECTION in models/qwen35_vl/configuration.py
and sums to half the rotary dimension (kv_channels * rotary_percent / 2 =
256 * 0.25 / 2 = 32), i.e. the same split the model used implicitly before,
so the trained model is unchanged.

* fix(mdp): let the capture window, not pipeline rank, decide who keeps pixels

Upstream NVIDIA#6081 drops pixel_values off every non-first pipeline stage, on the
premise that only the first stage holds the vision encoder. That premise does
not hold under MDP: the encoder is a separate replicated domain, and which
rank must materialize a microbatch's pixels is decided by the capture window,
so a rank that is not PP stage 0 can still be the owner.

The merge applied both rules at once, which broke every MDP run with PP > 1:
the collate still emits image_grid_thw on every stage, so a stage that
dropped the pixels but kept the grids tripped MDP's payload check

MdpConfigurationError: MDP: microbatch 1 violates: pixel data and grid
metadata either both exist or both are absent (items without pixels).

Keep the pipeline rule for the native path and defer to MDP's own
pixel_capture_suppressed() when MDP is enabled.

* fix(mdp): express VPP through the hybrid layer pattern, not a CLI flag

Since the Qwen3.5-VL HybridModel migration, virtual pipeline stages are
derived from the '|' segments of --hybrid-layer-pattern, and passing the old
flag is rejected outright:

AssertionError: --num-virtual-stages-per-pipeline-rank should not be used
with --hybrid-layer-pattern. Virtual pipeline stages are derived from the
number of | segments in the pattern.

run_mdp_experiments.sh still emitted --num-virtual-stages-per-pipeline-rank,
so every VPP>1 configuration failed at argument validation -- in the proxy
matrix that is the ep-overlap cell, which needs VPP>1 because EP overlap
requires it when PP>1.

Drop the flag and split the pattern into PP x VPP segments instead. The study
shape (NUM_LAYERS=8, PP=2, VPP=2) now yields GEGE|GE*E|GEGE|GE*E/*E.

VPP=1 deliberately emits no '|' at all, leaving the segmentation implicit:
Megatron splits evenly, which is the same layout, so the pattern for every
other cell is byte-identical to before and their results stay comparable.
