Adds SFT support for MiniMax M3 (MiniMaxAI/MiniMax-M3, model_type=minimax_m3_vl, MiniMaxM3SparseForConditionalGeneration) on the pinned transformers==5.16.1, on Ascend NPU and GPU. It includes:
patchgen modeling;
MiniMax sparse attention (MSA) operators on packed TND input;
the SwiGLU-OAI routed-expert activation in the fused MoE kernels, with EP;
Ulysses SP;
a runtime checkpoint converter for the public checkpoint layout;
the processor/data path;
GPU and NPU example configs.
Rebased onto main after #1142 (OpSlot → VeomniOp). The model now constructs instance-local VeomniOp handles, SwiGLU-OAI experts are a moe_experts/swiglu_oai registry variant on the reorganised moe_experts/ kernels, and the tests follow the new tree.
Review guide. The diff is about 11.6k lines, but about 6.5k of them are patchgen output under veomni/models/transformers/minimax_m3_vl/generated/, which check_patchgen verifies, and about 2.5k are tests. The hand-written core is about 2.6k lines. Suggested reading order:
Validation methodology. Each step builds on the previous one:
Parity with native transformers. At batch size 1, VeOmni's loss matches native transformers exactly.
VeOmni baseline. At larger batch sizes, the loss stays within 3% of native transformers. This run is the VeOmni baseline.
Features on top of the baseline. Fused operators, EP and Ulysses are then validated against that baseline.
The precision results below were produced on this PR's code before the rebase onto the VeomniOp refactor. The rebase moves the MoE, RMSNorm, loss and vision-attention call sites onto the new registry without changing their math; NPU/GPU re-validation on the rebased code is in progress.
Scale of the hardware validation. The full model has not been trained yet. Two reduced configurations were run:
Precision alignment on a reduced-layer variant (~8B parameters): Ascend A3 / A5 vs H100 (reference), steps 1–406, shown below. 4 devices, EP=2, Ulysses=2, fused RMSNorm, on a mixed video / image / text dataset.
Full depth with experts reduced to 4 (~30B parameters): runs end to end on 16 devices, on a text-only dataset (dapo_math).
Triton / NPU fused MoE vs eager, fwd+bwd, incl. EP=2

Design & Code Changes
Model (veomni/models/transformers/minimax_m3_vl/)
GPU/NPU patchgen configs → generated/. Only the multimodal MiniMaxM3SparseForConditionalGeneration is generated.
Packed input only. The language model takes either the collator's varlen kwargs, or one sequence with batch size 1 and no padding. Padded or batch>1 inputs and KV cache / generate are rejected with explicit errors. CP is refused at model build by VeOmni's CP allow-list (check_context_parallel_supported), so the forwards do not repeat that check.
Vision features under SP. The vision tower pads its pixel rows to a multiple of sp_size * spatial_merge_size**2; after the SP gather the image/video features are trimmed to the real sum(t * h * w) // spatial_merge_size**2 tokens, so both the precomputed-mask masked_scatter and the no-mask fallback (get_placeholder_mask, whose count check is kept) see one feature per placeholder.
Language attention dispatch. Dense (full_attention) layers call the standard attention op selected by attn_implementation (a varlen FlashAttention backend whose veomni_* adapter runs the Ulysses all-to-all), exactly like other VeOmni models. Only sparse (minimax_m3_sparse) layers go through the MSA operators, so the operators carry no dense fallback.
Attention backend guard. Neither the vision attention nor the dense language layers pass a mask, so multiple media inputs need a varlen FlashAttention backend, and Ulysses needs a VeOmni veomni_* adapter. The dense language layers require the varlen backend for every input, including a single sequence: the patched language model builds no causal mask, so eager attention would attend to future tokens. Other backends are rejected at forward instead of silently mixing samples or leaking targets. The veomni_*_hub adapters are listed as flash-compatible, so HF does not swap them for MiniMaxAI/msa.
Op handles. RMSNorm (rms_norm/offset, fed a fp32 weight so 1 + weight is added in fp32), cross-entropy (ForCausalLMLoss bound once in __init__), experts (moe_experts/swiglu_oai), sparse attention (sparse layers), and the standard attention (vision and dense language layers) construct instance-local VeomniOps.
Ulysses (sparse layers). The main Q/K/V use the sequence/head all-to-all. The per-KV-group index Q is exchanged exactly like K, and the single-head index K is all-gathered.
checkpoint_tensor_converter.py. Converts the public layout (language_model.model.*, per-expert w1/w2/w3, index_{q,k}_proj, patch_merge_mlp) to the transformers 5.16 layout (fused gate_up_proj/down_proj, self_attn.indexer.*, …).
processing_minimax_m3_vl.py. Builds the native image/video processors and the tokenizer by concrete class. This is needed because the public checkpoint declares its processors only through a trust_remote_codeauto_map, and its bundled processor drops the chat template. It applies only to model_type=minimax_m3_vl checkpoints.
Router auxiliary loss is disabled. The Switch-style loss recomputes routing with softmax, while MiniMax routes with sigmoid + e_score_correction_bias.
The sparse-attention indexer is not trained.
Top-k block selection is not differentiable, and MiniMax has not published an indexer post-training objective.
The indexer is frozen at construction (requires_grad_(False)), so DDP does not wait for gradients that never arrive.
Its projections run under no_grad, so no unused autograd graph is built.
Ops
veomni/ops/kernels/minimax_sparse_attention/. Indexer + block-sparse attention on packed TND tensors, behind an interface that a kernel backend can replace without touching the model. On NPU the masked attention runs through torch_npu.npu_fusion_attention (sparse_mode=1, atten_mask=~keep), and block masks are expanded via bf16, which is exact.
MoE.
New moe_experts/swiglu_oai variant: an eager row matching the HF MiniMax expert loop, plus thin fused_triton / fused_npu wrappers over the standard paths. Other implementations (e.g. fused_quack) fail at model build.
MergedFc1TritonFusedMoeExpertFunction, group_gemm_fused_moe_forward (moe_experts/standard/triton.py), EPMergedFc1GroupGemm (moe_experts/shared/ep.py) and the NPU path (standard/npu.py) get an optional swiglu_alpha. The default None keeps every other MoE model on the unchanged SiLU path, including [ops, perf] refactor: reduce merged MoE backward activation lifetime #1306's buffer lifetimes.
The SwiGLU-OAI forward/backward helpers live next to the clamp in moe_experts/shared/swiglu.py.
Ulysses.prepare_ulysses_qkv is refactored with no behavior change, and the new gather_seq_scatter_kv_heads is exposed for per-KV-group tensors.
Shared code (cross-modality)
veomni/data/data_transform.py. The image/video loading in _process_sample_qwen_vl_base is extracted into _prepare_vlm_media_inputs (no change to Qwen behavior), and process_sample_minimax_m3_vl is added.
veomni/data/chat_template.py. Adds MiniMaxM3VLChatTemplate, which renders the checkpoint's native template turn by turn and labels assistant turns only.
veomni/trainer/vlm_trainer.py. The tower lookup and the vit_lr group also match vision_tower. This also moves any other VLMTrainer model whose tower is named vision_tower into the vit_lr group. Among shipped models only gemma3 is named that way, and no recipe trains it through VLMTrainer.
veomni/data/dummy_dataset.py. Adds DummyMiniMaxM3VLDataset for e2e tests.
Validation scale. Full-model training (all layers and all experts, on the complete public checkpoint) has not been validated. Precision alignment used a reduced-layer ~8B variant, and the full-depth run used 4 experts (~30B) on text-only data.
Weight export. Exported HF weights use the transformers-native layout. vLLM/SGLang need the original layout, so they cannot serve an export directly, and verl rollout weight sync is not supported yet (no export_weights). Planned as a follow-up.
GPU attention. GPU language-model attention is the eager reference (O(S²) memory; the recipe's 4096 fits) until a GPU sparse-attention kernel lands.
Not supported:
tool-call conversations;
the text-only MiniMaxM3VLForCausalLM;
CP;
ep_sharded_stream_load with the public per-expert layout.
Cambricon MLU (moe_experts/swiglu_oai has no MLU row).
LoRA is not validated. Name-suffix targets such as q_proj would also wrap the frozen indexer; the docs give a regex exclude_modules example.
Image resolution. Images use the checkpoint's native max_pixels (451584) unless model.processor_config overrides it.
Follow-ups:
The router runs under the bf16 mixed-precision policy, while the public checkpoint stores gate.weight / e_score_correction_bias in fp32. Keeping the router out of mixed precision (get_ignore_modules_in_mixed_precision) is a candidate follow-up.
count_flops.py has no MiniMax M3 estimator yet, so logged MFU is 0.

Merge Risk: Low · previous review 75368
The remaining concerns are narrow documentation, registry-input, and partial-metadata cases. Correct the activation guidance and confirm the earlier concerns are addressed; they do not establish a broad failure of the new training path.
Security architecture risk: Low · up to a840b
The inspected training path derives sequence boundaries internally and rejects incompatible execution modes. No exploitable boundary bypass or privilege expansion was established. Coverage remains incomplete, so this is not an all-clear assessment.
Retained concerns
No architecture-level concerns identified.
Security review details
Security Blast Radius
inferred — The inspected operations affect media, tokens, and ranks participating in the configured training forward. The evidence does not establish a separately authorized tenant, datastore, or privileged service boundary at these library calls, so broader attacker reachability and maximum production exposure remain unproven.
Security Findings and Attack Paths
inferred — Inconsistent direct-call metadata can change attention boundaries or cause execution failure. However, the inspected trainer obtains its metadata hook from the loaded model, and collation recomputes the relevant layout fields. Without a demonstrated lower-trust path that overrides those fields, this is not a verified security-boundary bypass.
Trust Boundaries and Controls
observed — The strongest inspected isolation controls are producer-derived sequence boundaries, separate visual padding segments, rejection of non-varlen multi-media attention, and rejection of unpacked sequence-parallel language inputs. The routed test ranges exercise these contracts rather than introduce externally accessible entrypoints.
Resilience and Maintainability Implications
inferred — The inspected layout path constructs per-batch metadata and forward-local tensors rather than introducing durable metadata ownership or a rollback transaction. This limits persistent cleanup obligations, but does not establish recovery guarantees for interrupted or rank-divergent distributed execution.
Hardening Proposals
proposed — If lower-trust custom input adapters are supported, keep layout fields producer-owned or validate their consistency once on CPU before distributed execution. Explicitly document that arbitrary attention masks and independently supplied boundaries are outside the supported training contract.

Exercise an allowed vision backend in the acceptance cases.
_RecordingVisionLayer bypasses attention. The accepted two-media and Ulysses cases therefore pass without checking media isolation or shard exchange. The real vision layer dispatches through the configured attention interface. (raw.githubusercontent.com) Keep the recorder for metadata assertions, but add output and gradient checks with real attention, including a multi-rank Ulysses case. As per path instructions: “Prefer tests that catch rank, shape, device, and packing bugs. Flag tests that mock away the behavior under test, or that only run on one hardware path when the change is device-sensitive.”

…MiniMax M3 VL support
MiniMax M3 VL (MiniMaxAI/MiniMax-M3) support rebuilt on main after the
OpSlot -> VeomniOp refactor (ByteDance-Seed#1142), the moe_experts reorganisation, and
the test-tree reorganisation.
- Modeling: patchgen GPU/NPU configs construct instance-local VeomniOps:
rms_norm/offset (fp32 1 + weight), cross_entropy_loss via ForCausalLMLoss,
moe_experts/swiglu_oai, minimax_sparse_attention indexer/attention, and
attention/standard for the vision tower. Packed-only language attention,
Ulysses with per-KV-group index-query exchange, frozen indexer, vision
attention guard for varlen and veomni_* backends, router aux loss disabled.
- Ops: minimax_sparse_attention eager rows (npu_fusion_attention on Ascend);
moe_experts/swiglu_oai rows (eager, fused_triton, fused_npu) reusing the
standard merged-fc1 Triton/NPU/EP paths through an optional swiglu_alpha;
SwiGLU-OAI helpers in moe_experts/shared/swiglu.py; Ulysses
gather_seq_scatter_kv_heads.
- Data/trainer: MiniMax processor, chat template and data transform; shared
VLM media loading; vision_tower lookup and vit_lr grouping.
- Checkpoint: runtime converter for the public checkpoint layout.
- Tests, configs and docs for the above.
…en attention
Dense (full_attention) language layers now call the standard attention
VeomniOp selected by attn_implementation, like other VeOmni models; its
veomni_* adapter runs the Ulysses all-to-all. Only sparse layers go
through the MiniMax sparse attention operators, which drop their dense
causal fallback and require block_indices.
The vision and dense-language backend checks share one helper that
rejects non-varlen backends for multiple packed sequences and non-VeOmni
backends under Ulysses. The single-sequence fallback builds cu_seq_lens
on the device (host on NPU) so CUDA FlashAttention can consume it.
…scattering
Under SP the vision tower pads its pixel rows to a multiple of
sp_size * spatial_merge_size**2, so the gathered projector output ends with
features of that synthetic tail. The precomputed-mask path ignored them
(masked_scatter reads only the masked count), but the fallback for callers
without image_mask / video_mask runs get_placeholder_mask, whose exact
feature/token count check failed: SP=2 with a 1x2x2 grid gathered two
features for one placeholder.
Trim the gathered image/video features to sum(t * h * w) // merge**2, read
from the host grid list when the collator provides it, so both paths and
image/video_hidden_states see one feature per placeholder.
…rs on every input
The patched MiniMax M3 language model builds no attention mask: dense
(full_attention) layers rely on the backend for causality. The varlen
FlashAttention adapters and SDPA apply it through module.is_causal, but the
model's eager_attention_forward only adds a mask when one is passed, so a
single unpadded sequence on eager let every token attend to future tokens.
The backend guard only rejected non-varlen backends for multiple packed
sequences or Ulysses, so that case ran and leaked training targets.
The guard takes a causal flag: dense language attention now requires a
varlen FlashAttention backend for every input, while the bidirectional
vision attention keeps accepting other backends for a single media input.
…I EP tests
The accelerator CI scheduler (ByteDance-Seed#1336) requires a launch_plan marker on cases that start a two-rank torchrun; mark the GPU and NPU SwiGLU-OAI EP parity tests like the other two-rank tests.

Please keep NPU vision sequence metadata on the CPU throughout preprocessing and forward. Moving cu_seqlens to the accelerator and then calling .cpu() introduces an avoidable synchronization on every vision forward.

Thanks for catching this, and you're right that the round trip is avoidable. It comes from framework-wide behavior: BaseTrainer.preforward moves all batch tensors, including multimodal_metadata, to the device, and keeping that metadata on CPU would affect every model. We'd rather address it properly at the framework level in a follow-up than special-case MiniMax here. In the meantime, the .cpu() runs only once at the start of the vision forward, before the ViT and LLM compute is dispatched, so its impact should be small. Hope that works for you, and happy to discuss if you see it differently.

[P2] On NPU, cu_seqlens is moved to embeds.device and immediately copied back with blocking .cpu(), adding a host synchronization to each vision forward. Keep this metadata on CPU through batch transfer and forward, and construct fallback boundaries there too; changing only the local .to() leaves BaseTrainer.preforward moving it to NPU.

…t fallback
Without cu_seq_lens_q the text model treats the input as one packed
segment and drops attention_mask, so a mask such as [0, 0, 1, 1] let
real tokens attend to padding. Require the mask to be None or a 2D
all-ones mask on this path; the collator path is unchanged and still
sync-free. Add a regression case to the rejection test.
…l-gather
Under Ulysses every sparse layer gathered the index key through
gather_outputs, whose shape exchange reads the sizes back to the host
and so synchronizes once per sparse layer. The index key has no grad
and equal-length shards, so gather it with the fixed-size
_all_gather_into_tensor, which sizes the buffer from local metadata.
Document that this gather is not differentiable, so a trainable
indexer would need an autograd-aware gather.
…issing
The fallback max was only computed on the path that also rebuilds
cu_seqlens, so a caller passing vit_metadata with cu_seqlens but no
max_seqlen hit an UnboundLocalError. Derive it from the host-side
grid_thw_list whenever max_seqlen is absent.
…experts
The op-selection note named only swiglu_alpha. Spell out that gate is
clamped to max=swiglu_limit and up to [-swiglu_limit, swiglu_limit]
before the (up + 1) * gate * sigmoid(swiglu_alpha * gate) activation.
The registry accepted any architecture containing
ForConditionalGeneration and returned the sparse conditional-generation
class for it. Accept only MiniMaxM3SparseForConditionalGeneration, the
one class the checkpoint converter and parallel plan support.

Model (
veomni/models/transformers/minimax_m3_vl/)generated/. Only the multimodalMiniMaxM3SparseForConditionalGenerationis generated.generateare rejected with explicit errors. CP is refused at model build by VeOmni's CP allow-list (check_context_parallel_supported), so the forwards do not repeat that check.sp_size * spatial_merge_size**2; after the SP gather the image/video features are trimmed to the realsum(t * h * w) // spatial_merge_size**2tokens, so both the precomputed-maskmasked_scatterand the no-mask fallback (get_placeholder_mask, whose count check is kept) see one feature per placeholder.full_attention) layers call the standardattentionop selected byattn_implementation(a varlen FlashAttention backend whoseveomni_*adapter runs the Ulysses all-to-all), exactly like other VeOmni models. Only sparse (minimax_m3_sparse) layers go through the MSA operators, so the operators carry no dense fallback.veomni_*adapter. The dense language layers require the varlen backend for every input, including a single sequence: the patched language model builds no causal mask, so eager attention would attend to future tokens. Other backends are rejected at forward instead of silently mixing samples or leaking targets. Theveomni_*_hubadapters are listed as flash-compatible, so HF does not swap them forMiniMaxAI/msa.rms_norm/offset, fed a fp32 weight so1 + weightis added in fp32), cross-entropy (ForCausalLMLossbound once in__init__), experts (moe_experts/swiglu_oai), sparse attention (sparse layers), and the standard attention (vision and dense language layers) construct instance-localVeomniOps.checkpoint_tensor_converter.py. Builds the native image/video processors and the tokenizer by concrete class. This is needed because the public checkpoint declares its processors only through atrust_remote_codeauto_map, and its bundled processor drops the chat template. It applies only tomodel_type=minimax_m3_vlcheckpoints.sigmoid + e_score_correction_bias.requires_grad_(False)), so DDP does not wait for gradients that never arrive.no_grad, so no unused autograd graph is built.Ops
