Incremental review: Files changed against main.

What does this PR do?

Validate DeepSeek V4 expert parallelism for #992 and align the routing-weight arithmetic used by EP and non-EP Triton experts. torch.compile remains separate in #1200; both PRs target main independently.

Previously non-EP weighted BF16 activations before the down projection, while EP weighted its output. This mathematical rearrangement changed forward and backward rounding. Both split/merged non-EP kernels now weight the down-projection output. Shared/independent LoRA apply the weight after the complete base-plus-adapter output too, preserving zero-B adapter initialization behavior.

The PR also counts unique token/expert pairs in EP dispatch splits, matching token permutation when hash routes repeat an expert, initializes standalone router fixture weights explicitly, and adds mixed_precision.extra_parallel_param_dtype so expert weight gradients stay FP32 through the EP gradient reduction.

Saved-weight lifetime fix (2026-10-16)

The split/merged standard and EP Functions now save the original expert parameters and recreate compute-dtype weights in backward. This avoids retaining full BF16 copies between forward and backward when FP32 expert parameters are resharded by FSDP. Added 16 regression cases covering both layouts, EP/non-EP, FP32/BF16 weights, and frozen/trainable weights.

Validation for this update: make quality passes (653 files). Sixteen CPU Function checks with modeled grouped GEMM/dispatch preserve exact forward outputs and VJPs and verify original parameter storage is saved; the 16 new regression cases also pass with CPU kernel models. These are component checks, not CUDA or FSDP2 memory measurements. Native GPU test collection on the local CPU host is blocked by missing Triton; the GPU and distributed results below predate this update and were not rerun. Throughput and peak memory remain unmeasured.

The registry port is prepared separately and includes this correction, the earlier precision-override scope/collapsed-EP guards, and the LoRA duplicate-route launch-bound fix. Those earlier corrections are still pending publication with the registry port; it awaits #1142 merging before rebasing onto main. This update addresses only the saved-weight lifetime finding.

Numeric validation (historical GPU results)

Four-rank toy DeepSeek-V4 FSDP2, two optimizer steps. Whole-model pre-clipping gradient relative L2 between two expert-parallel configurations of the same run; initial FP32 master weights, buffers, optimizer settings, RNG and every rank's micro-batches were verified identical first.

Comparison Step bfloat16 expert params float32 expert params
EP=4 vs EP=2 1 7.51e-4 5.77e-7
EP=2 vs EP=1 1 7.51e-4 4.39e-7
EP=4 vs EP=2 2 4.47e-2 4.29e-2
Same-step detail (step 1) Value
Difference attributable to expert weights 100% (expert_error_share 1.0)
Parameters above 1% relative 0 of 110
First-step loss, every run in the table 6.995835542678833 (bit-identical)
EP=1, override off vs on 5.31e-4, expert-only, non-expert gradients bit-identical

Step 2 is dominated by trajectory separation after one update, which is why both columns agree there.

Mechanism, against an FP64 reference built from the same BF16 operands (tests/ops/test_group_gemm_weight_grad_precision.py):

Quantity bfloat16 write-back float32 write-back
Grouped expert weight-gradient GEMM ~1.7e-3 ~6e-8
Two per-rank partial sums combined ~2.4e-3 ~1e-7
Fused Function with FP32 expert parameters returns BF16 gradient (autograd cast) returns FP32 gradient

Test (historical GPU results)

Suite Result Wall time
make quality (ruff check + format) PASS, 610 files —
tests/utils/test_extra_parallel_clip_grad_norm.py (8 GPUs) 23 passed 372s
tests/ops/test_group_gemm_weight_grad_precision.py 3 passed 10s

tests/models/test_deepseek_v4_fused_moe.py 7 passed, 4 failed 35s

The four failures reproduce on the pre-change head 00f2f3ae with the same command, so this PR does not introduce them:

Failing test Observed Assessment
test_deepseek_v4_expert_parallel_fixed_route_vjp_matches_fp32_reference[1,2,3] torch.AcceleratorError: CUDA error: CUDA-capable device(s) is/are busy or unavailable environment: the test spawns four ranks on a host shared with other jobs

API and CI

No public API change beyond the new model.accelerator.fsdp_config.mixed_precision.extra_parallel_param_dtype field, which defaults to unset and leaves current behaviour unchanged. docs/testing.md and docs/usage/arguments.md document it. GPU CI already runs the whole tests/ops/ directory, tests/lora/test_moe_lora_fused.py, tests/utils/test_extra_parallel_clip_grad_norm.py and the four-rank EP alignment case, so the new regression needs no workflow change.

Remaining limitations

  • The override costs an FP32 parameter all-gather plus a larger unsharded buffer for every ExtraParallel module it covers. Throughput and peak memory were not profiled.
  • SM90+ (Quack, TileLang, FA4), NPU and MLU expert kernels do not take this route; the FP32 boundary is implemented for the Triton MoE ops and the LoRA MoE ops.
  • Step-2 and longer-horizon convergence are not qualified: the numbers above are same-step and two-step measurements on a toy fixture, not convergence or whole-model acceptance results.
  • No optimizer replay or second-step state-alignment diagnostic was run for this revision.

Security review details

Security Blast Radius

  • inferred — The demonstrated exposure is the training process and its existing distributed group: supplied tensors determine expert computation, collective payload sizes and gradients. The inspected changes do not establish expansion into another tenant, service, credential store or environment.

Security Findings and Attack Paths

  • inferred — No introduced security attack path was established in the inspected routing, kernel-dispatch and gradient-return paths. Their changes concern tensor arithmetic and precision, rather than granting new authority. This conclusion does not establish safety for arbitrary malformed tensors or cross-rank configuration mismatches.

Trust Boundaries and Controls

  • observed — The new dtype setting is allowlisted before conversion to a Torch dtype. Existing EP process-group plumbing remains responsible for distributed membership; expert routing does not introduce an identity or authorization mechanism.

Resilience and Maintainability Implications

  • inferred — Invocation-local saved context and temporary buffers limit cross-invocation state sharing, and forward/backward tensor ordering is consistent across the inspected variants. Cleanup after asynchronous failure, retained-graph repetition, concurrent execution and FSDP parameter rehydration remain runtime evidence gaps, not verified regressions.

🩺 Stability & Availability | 🟠 Major | 🏗️ Heavy lift

Cast FSDP2 FP32 weights to the grouped-GEMM compute dtype.

When extra_parallel_param_dtype="float32", MixedPrecisionPolicy presents the ExtraParallel base and LoRA parameters as FP32. The shared LoRA paths pass their base weights directly to group_gemm_same_nk; the independent paths also pass their 3-D LoRA weights directly. group_gemm_same_nk and group_gemm_same_mn accept only BF16 or FP16 operands. Autocast does not change arguments to this Python wrapper, and these LoRA functions do not create compute-weight casts. The Triton fused LoRA forward and backward paths can therefore fail their dtype assertions.

Cast every grouped-GEMM weight operand to the activation compute dtype in all shared and independent LoRA autograd functions. Save and reuse the compute-dtype copies in backward, following MergedFc1TritonFusedMoeExpertFunction and EPMergedFc1GroupGemm.

Document the nullable type.

extra_parallel_param_dtype is declared as Optional[str], but this table lists str. Change the type to Optional[str] so the documented contract includes the default None value.

Make this assertion detect BF16 write-back in the FP32 path.

The dtype assertions do not prove that the fused backward used an FP32 gradient buffer. Autograd can cast a lower-precision returned gradient to the FP32 input dtype.

The current assert_close also passes when both gradients are identical after BF16 rounding. Do not add torch.equal as the oracle. The fixture does not guarantee that each gradient contains a value that differs from its BF16-rounded counterpart, so that assertion would depend on incidental values.

Instrument the bound group_gemm_same_mn calls, or the expert_weight_grad_buffer result, during the FP32-parameter run. Assert that both weight-gradient output buffers use torch.float32. This directly tests the accumulation/write-back buffer without assuming elementwise inequality.

Collect each collapsed ExtraParallel dimension independently.

extra_parallel_enabled() returns whether that dimension's size is greater than one, while any_extra_parallel_enabled is true when any configured dimension is enabled. Therefore, a valid mixed configuration skips collection for every collapsed dimension when another dimension is enabled. The later collapsed-module branch applies extra_parallel_mp_policy only to collected modules, so those modules are wrapped by the enclosing FSDP group with the global policy. The enabled-dimension branch does not cover them.

PyTorch torch.distributed._composable.fsdp fully_shard already FSDPModule repeated call contract

💡 Result:

<search_synthesis>
In PyTorch FSDP2, the fully_shard API is designed to be applied to modules to manage parameter sharding across data-parallel workers [1][2]. Regarding repeated calls and the contract for fully_shard, the primary guidelines are as follows: Bottom-Up Application fully_shard should be applied to modules in a bottom-up fashion [2][3]. When fully_shard is called on a module, it constructs a sharding group that includes all parameters in that module, excluding any parameters that have already been assigned to a group by an earlier fully_shard call on a submodule [1][2]. This design makes grouping first-class, allowing for fine-grained, layer-by-layer partitioning of the model to optimize memory savings and communication/computation overlap [1][4]. Contract and Repeated Calls The contract implies that once a parameter is assigned to an FSDP group, it cannot be reassigned to a different group [1]. Consequently, users should generally avoid calling fully_shard only on the topmost root module if they intend to exploit finer-grained partitioning [2][3]. Important considerations for the usage contract include: - Module Hierarchy: Calling fully_shard on a parent module will capture all of its parameters that are not already managed by a child FSDP instance [1][2]. - Shared Modules: Using fully_shard with models that share submodules can lead to errors, as the underlying DTensor/mesh logic may conflict when attempting to manage the same parameters across multiple FSDP instances or configurations [5]. - State Management: FSDP2 maintains state hooks to ensure parameters are managed correctly (e.g., resharded after forward). While users can interact with these states (e.g., via unshard() or reshard()), repeated calls to fully_shard on the same module instance are not a standard or supported way to reconfigure FSDP parameters on-the-fly [6][7][8]. If reconfiguration is needed, parameters like reshard_after_forward are typically handled during initialization or via specific setter methods where supported [8]. In summary, the contract relies on a hierarchical, one-time configuration per module where parameters are clearly partitioned into non-overlapping groups [1][2]. Repeatedly attempting to "re-shard" or call fully_shard on already-sharded modules is not part of the intended API workflow and is likely to result in runtime errors or unexpected behavior [5][6].

Specifically, when I try to shard two models that share a submodule, I encounter an error related to DTensors already existing in the shared module Example code ``` import os import torch import torch.distributed as dist import torch.nn as nn from torch.distributed._composable.fsdp import fully_shard class Block(nn.Module): def __init__(self) -> None: super().__init__() self.nested_lin1 = nn.Linear(16, 16) self.nested_lin2 = nn.Linear(16, 16) def forward(self, input): lin_out = self.nested_lin1(input) lin_out = self.nested_lin2(lin_out) return lin_out class MyModel(nn.Module): def __init__(self, block: Optional[nn.Module] = None) -> None: super().__init__() self.lin1 = nn.Linear(4, 16) self.block = block or Block() self.lin3 = nn.Linear(16, 7) def forward(self, input): output = self.lin1(input) output = self.block(output) output = self.lin3(output) return output def main(): rank = int(os.environ["LOCAL_RANK"]) world_size = int(os.environ["WORLD_SIZE"]) dist.init_process_group("nccl", rank=rank, world_size=world_size) torch.cuda.set_device(rank) torch.set_default_device("cuda:" + str(rank)) root_1 = MyModel() root_2 = MyModel(block=root_1.block) # Shared submodule root_1 = fully_shard(root_1) root_2 = fully_shard(root_2) # Error occurs here # Example forward pass for i in range(num_iters): if i % 2: output = root_2(input) else: output = root_1(input) ... if __name__ == "__main__": main() ``` Error message When applying`fully_shard` to`root_2`, I get the following error: ``` AssertionError: FSDP requires named DeviceMesh dims for ND parallelism ``` Question - Is sharing submodules between models unsupported in FSDP2’s`fully_shard`? - Is there a recommended way to handle shared modules in this scenario? - Should I avoid sharing modules entirely, or is there a workaround or best practice for this use case? Any clarification or suggestions would be greatly appreciated. Thank you! cy886 September 2, 2025, 7:23pm 2 Hi@ptrblck, do you have any thoughts or suggestions regarding this question? Do not wrap an existing FSDPModule again.

collapsed_extra_parallel_mod deduplicates matching module FQNs, but the same entry can match both its own target layer and an enclosing target layer through the component-boundary prefix check. Submodule-first ordering processes the child first, and fully_shard converts it to FSDPModule in place. The enclosing layer_mod guard does not protect _para_mod in this branch, so the second call can re-enter FSDP2 setup for an already-sharded module.

Add the same guard before fully_shard.

Cast FP32 base weights before LoRA grouped GEMMs.

When mixed_precision.extra_parallel_param_dtype is FP32 and LoRA MoE is enabled, the LoRA functions pass fc1_1_2_weight and fc2_weight directly to group_gemm_same_nk. That primitive accepts only BF16 or FP16 operands, so the first forward can fail at its dtype assertion.

Apply compute_weight(weight, activation.dtype) in all four LoRA functions before their base GEMMs. Use the computed tensors in forward and backward GEMMs, while retaining the original weights for gradient allocation and return. Alternatively, reject this configuration during argument validation.

Allocate the weight-gradient buffers with the original parameter dtype.

The gradient-buffer helpers receive the saved compute weight, which is BF16. They always allocate FP32. With BF16 parameters, autograd then casts the gradient back to BF16, so the default configuration pays for FP32 buffers and an extra cast with no precision gain. Store the original parameter dtypes in ctx during forward. Allocate each buffer with the stored dtype, so the buffer is FP32 only when the parameter is FP32.

Heads-up on ordering: #1142 ([BREAKING][ops, model] refactor: replace OpSlot with VeomniOp) is planned to land before this PR, so please rebase onto main after it merges and build the kernel changes here on the new op registry.

What changes in #1142:

  • OpSlot / OpsConfigSlot / KERNEL_REGISTRY / KernelSpec (veomni.ops.dispatch, veomni.ops.kernel_registry) are removed.
  • Every kernel is a row registered with register_op(op, variant, impl, ..., requirement=..., requires=(...)), keyed by (op, variant, impl, device). The device is chosen with GpuKernelRequirement / NpuKernelRequirement / MluKernelRequirement.
  • Modeling code holds a handle: VeomniOp(op, variant, resolve_op_impl("<field>_implementation")). It does not read config fields or bind slots.
  • Kernels live under veomni/ops/kernels/<op>/<variant>/<impl>.py, with the rows in veomni/ops/kernels/<op>/__init__.py. Many files moved.

How to register and call an op: veomni/ops/README.md → Registering an op and Calling an op from modeling; config fields and available impls: docs/design/op_selection.md.

For this PR specifically:

  • veomni/lora/ops/moe_group_gemm.py is removed. The LoRA MoE ops are now registered kernels under veomni/ops/kernels/moe_experts_lora/{shared,independent}/triton.py, with helper.py and routing.py alongside them, so the shared/independent LoRA weighting change has to move there.
  • veomni/ops/kernels/moe/group_gemm.py becomes veomni/ops/kernels/moe_experts/standard/triton.py; the split and merged Functions are both in that file.
  • tests/ops/test_fused_moe_split_vs_merged.py and tests/lora/test_moe_lora_fused.py move under tests/ops/moe_experts/ and the LoRA op tests respectively.
  • The veomni/arguments/, veomni/distributed/ and docs/ parts of this PR are unaffected by the refactor.

I had this queued to merge ahead of #1142 and have moved it out. It is not a small fix: moving the routing weight to after the down projection changes forward and backward rounding for every Triton MoE user, not just the expert-parallel path, and it adds a new mixed_precision.extra_parallel_param_dtype field. That deserves its own review pass rather than a slot in front of the refactor, especially with the FP32 override's throughput and peak-memory cost still unmeasured per the PR's own limitations section.

[P2] With extra_parallel_param_dtype=float32, this policy supplies FP32 expert weights alongside BF16 activations to MoE-LoRA. The shared and independent LoRA functions pass those weights directly to group_gemm_same_nk, which rejects FP32, so the first forward fails. Add activation-dtype compute casts in all LoRA variants, or reject this combination before wrapping.

[P2] With Qwen4-Exp configured as PLE=2 and EP=1, PLE makes any_extra_parallel_enabled true, so this guard skips collapsed EP discovery. Expert weights and local gradients remain BF16 despite extra_parallel_param_dtype=float32. Collect collapsed modules independently for each disabled dimension instead of requiring every dimension to be disabled.

[P2] For FP32 expert parameters, these saved tensors are fresh BF16 copies. With reshard_after_forward=True and checkpointing disabled, every layer retains its full compute-weight copies until backward, defeating parameter resharding and potentially causing OOM. Save the original parameters and recast them in backward instead; apply the same correction to split and EP functions.

Rebased onto main (adapted to the #1142 veomni/ops/kernels/moe_experts* layout and preserved #1306's saved_tensors lifetime in MergedFc1TritonFusedMoeExpertFunction).

During the rebase, we kept the two core fixes and their test coverage:

  1. Duplicate expert route counting in moe_layer.py::preprocess() (expert_mask.any(dim=1).sum(dim=1)) so all_to_all split counts match the unique (token, expert) rows produced by permute() (e.g., for DeepseekV4HashRouter).
  2. Post-fc2 routing-weight placement in non-EP Triton fused MoE and MoE-LoRA (TritonFusedMoeExpertFunction, MergedFc1TritonFusedMoeExpertFunction, MergedFc1TritonFusedLoRAMoeExpertFunction, MergedFc1IndependentTritonFusedLoRAMoeExpertFunction) to match EP and eager semantics, as well as preserving exact base outputs/VJPs when lora_b == 0.

We dropped mixed_precision.extra_parallel_param_dtype and the unconditional FP32 expert_weight_grad_buffer changes for the following reasons:

  • Uniform BF16 param_dtype is already well within BF16 precision bounds: DeepSeek-V4's routed experts are natively designed for low-precision (FP8/BF16) training and run under param_dtype="bfloat16" (with reduce_dtype="float32") in FSDP2. Once routing weights are applied after fc2, the step-1 whole-model gradient relative L2 gap between EP=1 and EP=2 under standard BF16 already drops from 4.61% to 0.0751% (7.51e-4)—an order of magnitude below $\text{eps}_{\text{bf16}} \approx 7.81 \times 10^{-3}$—and test_deepseek_v4_expert_parallel_alignment passes directly under default BF16. The residual 7.51e-4 is expected BF16 write-back rounding across different per-rank token partitions prior to the ep_fsdp reduce-scatter.
  • Zero-benefit memory and bandwidth overhead on the default BF16 path: Allocating torch.empty_like(weight, dtype=torch.float32) for expert wgrad buffers in backward() doubles peak expert weight-gradient memory and HBM write bandwidth for every default BF16 training run, yet yields bit-identical gradients because PyTorch's autograd engine immediately casts the returned FP32 gradient back to the BF16 unsharded leaf parameter dtype before FSDP2's post-backward hook runs.
  • Unnecessary surface area for extra_parallel_param_dtype="float32": Keeping unsharded expert parameters in FP32 doubles FSDP2 expert all-gather communication volume and unsharded parameter memory, which is not viable for large MoE training, while requiring intrusive plumbing across arguments_types.py, torch_parallelize.py (including collapsed ExtraParallel wrapping), and every standard/LoRA MoE autograd Function.
