[ckpt, trainer, rollout, vllm, doc] feat: decoupled_async trainer with rollout-pulled weights over one-sided reads - #8526
Adds decoupled_async, a v1 trainer mode in which the trainer never drives rollout. The trainer only publishes weight versions and enqueues prompts in TransferQueue. Each vLLM replica pulls new versions with one-sided reads and decides on its own when to load them, and a rollout-side dispatcher starts enqueued prompts once replicas have the weights they require.
In separate_async today, every step ends with CheckpointEngineManager.update_weights: abort all requests, release KV, build a topology, push weights, resume. The trainer waits for it and every replica pauses at once. In decoupled_async the trainer's per-step weight work is a copy into a host slot; replicas prefetch while generating and pause only to load (~1 s at 0.5B, ~1.5 s at 8B).
Related work and why this is not a duplicate.#8395 (sharded_nixl) moves only each rollout rank's TP/EP slice with NIXL writes, but stays trainer-pushed inside CheckpointEngineManager. #7108 is Megatron→SGLang P2P over Mooncake, also trainer-driven. #8168 adds standalone replica lifecycle APIs. This PR changes who drives the sync (rollout pulls on its own schedule) and removes the trainer's calls into rollout; it transfers full tensors. #8395's slice planning is the natural next step for sharded pulls on top of this.

Accuracy matches within single-seed noise, and every trajectory is generated by a single weight version. Before the prompt dispatcher existed (weights pulled, prompts pushed by the trainer), 1.8–2.0 versions per trajectory were typical because prompts dispatched right after a publish were aborted and re-prefilled. Performance is not optimized yet: at 8B a replica update (full-copy pulls through host memory, ~6.3 s) is longer than a training step, so prompts wait for it; the NCCL baseline moves the 16 GB in 1.35 s. min_version_lag=2 does not help (5.60 s per step), and admitting prompts on older weights would only get them aborted by the next update. Sharded pulls are the fix and are left for a follow-up; the goal here is separating rollout from the training loop.
New config (all additive): trainer.v1.decoupled_async.{num_warmup_batches, parameter_sync_step, min_version_lag, poll_interval, init_timeout, max_inflight_prompts, dispatch_poll_interval} and checkpoint_engine.engine_kwargs.transport_pull.{device, transport, num_slots, rollout_dtype, lease_ttl, registry_name}. The transport_pull backend also works under the existing CheckpointEngineManager flow.
registry.py: directory of published versions (READY → RETIRED → reclaimed) with TTL reader leases judged on the registry's clock; a named Ray actor scoped to the job.
publisher.py: the last num_slots versions live in pinned host buffers registered once; a slot is overwritten only after every lease on its version ends. fp32 weights are cast to rollout_dtype (bf16) on the way in.
puller.py: leases a version, reads all buckets into a local registered mirror, and rejects the copy if the lease lapsed mid-read.
nixl_native.py, transport.py: transports. nixl_native uses NIXL's bindings and runs on any torch; other names go to torch.distributed._transport (torch >= 2.15, which released vLLM does not support yet).
engine.py: the transport_pull checkpoint engine (send_weights publishes, prefetch, receive_weights).
update_agent.py: WeightUpdateAgent, one per vLLM replica. It prefetches a newer version while generating, then aborts in-flight requests, releases KV, loads the mirror, restores KV and resumes.
Trainer, verl/trainer/ppo/v1/:
trainer_decoupled_async.py: publishes at init and step end, enqueues prompts with a min_weight_version tag, and on resume only resets interrupted prompts to pending. Before validation, which bypasses the dispatcher, it waits for every replica to serve the newest version. It makes no calls that control rollout (24 in separate_async).
prompt_dispatcher.py: one per rollout service; claims pending prompts oldest first, up to max_inflight_prompts, once every replica has their version, and starts them on the agent loop workers.
standalone_rollout.py: StandaloneRolloutMixin with what separate_async and decoupled_async share (standalone replicas, DetachActorWorker, Decoupled PPO old log-probs), moved verbatim out of separate_async.
replay_buffer.py: in decoupled_async, a group's age for off-policy control (eviction, its metrics, and sample()'s assertion) is measured from the oldest weight version its trajectories started on; other modes keep the enqueue step. An optional health_check_fn runs on every poll so a failed agent or dispatcher fails the job instead of leaving sample() waiting.
Other fixes found along the way:
bucketed_weight_transfer.py: weights larger than the bucket that arrive in host memory are staged on the GPU before CUDA IPC (reduce_tensor on a CPU tensor yields a shared-memory handle that rebuild_ipc cannot rebuild). Hit by Qwen3-8B's 1.24 GB embedding. The staged copy is returned to the device after the receiver acks. This also affects nixl with device=cpu.
CheckpointEngineWorker.prefetch_weights for engines that support prefetching.
Review findings addressed since the first revision: the missing on_sample_end hook; pinned host buffers on CPU-only machines; fencing device-to-host copies before a version is announced; releasing the lease when a read fails; one staleness clock across eviction and sample(); syncing replicas before validation; the update agent loading the first version regardless of min_version_lag; counting rollout GPUs in throughput; the separate_async config comment.
Follow-ups (see the design doc): keep pause mode, version-aware routing, sharded pulls, a run epoch for resume once the registry outlives the job, reclaiming prompts from dead agent loop workers.

Important
Please check all the following items before requesting a review, otherwise the reviewer might deprioritize this PR for review.
Add / Update the documentation: docs/advance/decoupled_weight_sync.md.
Add unit or end-to-end test(s) to the CI workflow to cover all the code. If not feasible, explain why: the new *_on_cpu.py tests (transport, registry, update agent, prompt dispatcher, decoupled_async, replay buffer) run in the CPU workflow. The GPU tests need NIXL, which CI does not install yet, and test_vllm_weight_update_agent.py is not wired into vllm.yml yet.
If your PR is related to the recipe submodule, please also update the reference to the submodule commit via git submodule update --remote or cd recipe && git pull origin main.

Directory of published weight versions (READY -> RETIRED -> reclaimed) with
TTL leases judged on the registry clock, so the publisher only overwrites a
version once no reader can still be reading it. In-memory implementation plus
a client for a shared named Ray actor.

…torch.distributed._transport)
WeightPublisher keeps the last N weight versions in slot buffers registered
once with torch.distributed._transport and announces them in the registry;
a slot is overwritten only after every reader lease on its version ends.
WeightPuller leases the newest version, reads every bucket one-sided into a
local registered mirror, and rejects the copy if the lease lapsed mid-read.
The transport_pull backend wraps both so the existing CheckpointEngineManager
flow works unchanged: no topology and no per-step setup.
Tested on CPU with a fake transport; GPU test added (needs torch>=2.15).
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
Released vLLM (0.33) pins torch 2.14, but torch.distributed._transport needs
2.15. Add a small adapter with the same method surface over NIXL's own
bindings (backend=nixl_native), so publish/pull runs on today's torch.
The publisher now registers slot memory before binding, since a NIXL agent's
metadata carries its registrations.
Add a model-free GPU test: one publisher and three pullers on separate GPUs,
for both transports and both slot devices.
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
…e publishing
FSDP yields fp32 master weights, so an 8B model was published as 30.5 GiB and
two cuda slots ran trainer GPU 0 out of memory. Cast fp32 tensors to
rollout_dtype (default bf16, as the other engines' signatures) while copying
into a slot; other dtypes pass through, and None disables the cast.
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
A slot holds a full model copy, which rarely fits on a trainer GPU, and
torch.distributed._transport needs torch >= 2.15 on both sides while
released vLLM pins 2.14. Drop the cuda-slot case from the FSDP test.
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
Rollout replicas now load published weights on their own schedule:
- WeightUpdateAgent runs next to each standalone vLLM replica. When the
newest published version is min_version_lag ahead, every checkpoint
engine worker prefetches it into its host mirror while generation
continues; then the agent aborts in-flight requests (clients resubmit
them with partial output), releases KV, loads the mirror, restores KV and
resumes. Only that apply phase pauses generation.
- transport_pull gains prefetch(); CheckpointEngineWorker exposes it.
- trainer.v1.separate_async.decoupled_weight_sync.enable: the trainer only
publishes at init and at each step end; it never aborts or pauses
rollout and no CheckpointEngineManager is built for standalone replicas.
- The replay buffer measures staleness from the oldest weight version a
group's trajectories started on (min_global_steps), not from the step
the prompt was dispatched at.
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
Covers the publish/pull architecture, the rollout-side update agent and its
timing policy, the weight-version staleness clock, configuration, measured
GSM8K results against the trainer-driven baseline, and open follow-ups
(#1 for the per-request minimum weight version).
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
…over CUDA IPC
_direct_send_large_weight called reduce_tensor on the weight as given. For a
CPU tensor (transport_pull's pinned host mirror, or nixl with device=cpu) that
produces a shared-memory handle, and rebuild_ipc failed with 'list
assignment index out of range'. Hit by Qwen3-8B, whose 1.24 GB embedding
exceeds the 1 GB bucket. Stage such weights on the sender's device first.
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
…staging, vLLM agent test
- Stop the weight update agents in on_train_end.
- A failed agent leaves its replica paused, which could leave sample() waiting
forever when that replica is the only producer. ReplayBuffer now runs an
optional health_check_fn on every poll; decoupled mode points it at the
agent check so the job fails instead of hanging.
- BucketedWeightSender returns the GPU copy it stages for a large host tensor
to the device once the receiver acks (the worker shares the GPU with vLLM).
- GPU test: an agent keeps a real vLLM replica on the newest published
version, aborts a long request when it applies, and reports the version on
every output; greedy outputs confirm which weights are served.
Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com>
… dispatcher
Replace the decoupled_weight_sync flag on separate_async with its own mode.
The trainer only publishes weight versions and enqueues prompts:
- PPOTrainerDecoupledAsync (trainer.v1.trainer_mode=decoupled_async) has no
hybrid-lending code. It publishes at init and step end, writes prompts to
TransferQueue as pending with a min_weight_version tag, and on resume only
resets running prompts to pending.
- PromptDispatcher (Ray actor, rollout side) claims pending prompts, oldest
first and up to max_inflight_prompts, once every replica has loaded their
min_weight_version, and starts them on the agent loop workers.
- StandaloneRolloutMixin holds what separate_async and decoupled_async share
(standalone replicas, DetachActorWorker, Decoupled PPO old log-probs);
separate_async is otherwise back to main.
- The replay buffer's weight-version staleness clock keys on the mode.
Not yet run end to end; dispatcher has no dedicated unit test yet.

Added a decoupled asynchronous PPO training mode that lets rollout replicas update weights independently while prompts wait for replicas to reach the required version.
Added configurable controls for warmup, weight-update timing, version lag, prompt dispatch, and in-flight prompt limits.
Added support for NIXL-based weight publishing and pulling, including weight prefetching and version tracking.
Added support for standalone rollout servers in asynchronous training.
Bug Fixes
Improved weight-transfer handling for large weights stored on the host.
Added stale-prompt detection based on trajectory weight versions in decoupled asynchronous mode.
Documentation
Documented the new training mode, its configuration, behavior, benchmarks, and limitations.
This change adds a transport_pull checkpoint engine and a decoupled_async PPO trainer mode. The trainer publishes versioned weights, rollout replicas pull and apply them, and a dispatcher starts prompts after replicas meet their required weight versions.

The new decoupled_async mode can publish incomplete weights in its default CPU-slot configuration. Startup can also hang with a version lag of 2 or more, and training can abort on delayed but fresh groups. CI currently fails in the CPU unit tests and the config-doc sanity check. Fix these before merging.

Fix: pin_memory=True breaks the CPU-only CI job.
The cpu_unit_tests job fails in test_publish_then_pull_is_bit_exact. torch.empty(..., pin_memory=True) raises RuntimeError when no accelerator backend is present. The test uses device="cpu" with _FakeTransport, so it needs no pinned memory.
Pin the buffer only when an accelerator is available. WeightPuller._setup in puller.py has the same allocation. Put the fix in one shared helper, for example in transport.py, and use it in both files.

Fix: missing device synchronize when device == "cpu" and the source tensors are on a GPU.
copy_(..., non_blocking=True) from a CUDA tensor into a pinned host slot is asynchronous. TransportPullCheckpointEngine defaults to device="cpu". The trainer's get_per_tensor_param yields GPU tensors. The self.device != "cpu" check skips the synchronize in this case.
registry.publish then announces the version while D2H copies can still be in flight. A reader can pull partially written weights. The lease fence does not detect this, because the publisher is the one writing.
Synchronize whenever any source tensor is not on CPU.

If asyncio.gather raises or the fetch task is cancelled, fetch exits before release_lease. The lease can remain until lease_ttl, so WeightPublisher._acquire_slot can wait before reclaiming the slot. Cancel and await all bucket reads before releasing the lease, because asyncio.gather does not cancel sibling reads after one read raises.

Apply the first published version when no version is loaded.
On a fresh start, on_init_end publishes version global_steps = 0. The agent starts at self.version = -1, so the lag for that version is 1. With min_version_lag >= 2, the condition at line 79 stays false and the agent never loads it. on_init_end then waits in wait_for_version(0, init_timeout). No later version is published before that wait, so the wait fails when init_timeout expires.
The config accepts min_version_lag up to max_off_policy_threshold - 1, which is 7 with the default threshold of 8. Values from 2 to 7 are affected on a fresh start. A run that resumes from checkpoint step N publishes N first, and the check passes once N >= min_version_lag - 1.
The first load should not depend on the lag. Once a replica holds a version, the lag check still applies.

Use one staleness policy for decoupled_async.
_stale_terminal_keys() uses trajectory weight versions, but _has_enough_samples(), sample(), and the stale-eviction metrics still use prompt_global_steps. A prompt can wait in the dispatcher or rollout and then complete on fresh weights. Its enqueue-step age can exceed max_off_policy_threshold, so the sample() assertion can abort even though the stale-drop path considers the group fresh.
Use trajectory weight versions for completed groups and define the corresponding pre-trajectory version bound for pending and running prompts. Preserve the enqueue-step clock for other trainer modes. Do not use _oldest_weight_versions() alone for pending or running prompts because it only reads trajectory tags, which do not exist before generation starts.

Use one staleness policy across `_stale_terminal_keys()`,
`_has_enough_samples()`, `sample()`, and stale-eviction metrics in
`decoupled_async`: evaluate completed groups by trajectory weight version and
pending or running prompts against the corresponding pre-trajectory version
bound, without relying on `_oldest_weight_versions()` for prompts that lack
trajectory tags. Preserve the `prompt_global_steps` enqueue-step clock for other
trainer modes.

Implement the abstract sample-end hook
Selecting trainer.v1.trainer_mode=decoupled_async fails before initialization: PPOTrainer.on_sample_end() is abstract, and neither this class nor StandaloneRolloutMixin implements it. Consequently, the trainer_cls(config=config) call in main_ppo.py raises TypeError: Can't instantiate abstract class PPOTrainerDecoupledAsync. Implement the hook; a no-op would allow standalone generation to continue without leaving the trainer abstract.

Fence CUDA-to-host copies before publishing CPU slots
On subsequent publishes with the default device="cpu" and CUDA-backed weights, copy_(tensor, non_blocking=True) queues asynchronous transfers into the pinned host slot, but this condition skips synchronization because the destination is on CPU. The manifest can therefore become READY while DMA is still modifying its buffers, allowing rollout to read partially updated weights under an otherwise valid lease. Wait for the producing CUDA stream before publishing, or make the CUDA-to-host copies blocking.
The reason will be displayed to describe this comment to others. Learn more.
Use the weight-version clock in the final sampling assertion
For prompts delayed in the dispatcher, this branch can correctly accept fresh trajectories that ReplayBufferAsync.sample() subsequently rejects using its unchanged enqueue-step assertion. For example, with threshold 2, a prompt enqueued at step 1 but generated on version 4 is fresh at step 5, yet sampling raises AssertionError: drop strategy selected stale prompts: spans=[5]. Update the final selected_spans check to use the same weight-version clock so valid delayed work does not crash training.
The reason will be displayed to describe this comment to others. Learn more.
Bootstrap the first version independently of the lag threshold
On a fresh run with the supported min_version_lag=2, the initial published version is 0 and self.version is -1, so this condition never applies the initial weights. PPOTrainerDecoupledAsync.on_init_end() waits for version 0 before training can publish another version, causing startup to time out rather than reach the required lag. Always load the first available manifest independently of the steady-state lag policy.
The reason will be displayed to describe this comment to others. Learn more.
Synchronize validation to the newly published policy
When periodic or final validation is enabled, PPOTrainer.fit() calls _validate() immediately after this hook, but _publish_weights() only reads agent states without waiting for the published version to load. Validation submits directly to the agent workers, bypassing the dispatcher's version gate, and this trainer inherits the no-op on_validate_begin(). If replicas are still prefetching, evaluation therefore uses previous weights or resumes partial outputs across the update while logging the score for the current step. Ensure replicas have applied the intended published policy before validation starts.

Count standalone rollout GPUs in throughput normalization
In decoupled_async, these standalone replicas allocate GPUs outside the trainer's resource-pool manager, but the new trainer inherits PPOTrainer._get_n_gpus_for_throughput(), which counts only that manager's GPUs. The corresponding override remains exclusively in PPOTrainerSeparateAsync rather than the shared mixin. A 4-training/4-rollout run is consequently normalized by 4 instead of 8 and reports twice its actual per-GPU perf/throughput, invalidating comparisons between the modes. Share or implement the standalone-aware GPU counter.
…ng on_sample_end
PPOTrainer declares on_sample_end abstract, so PPOTrainerDecoupledAsync could
not be instantiated. Add it as a no-op: rollout keeps generating.
Tests: the dispatcher's version gating, in-flight cap, oldest-first claims,
no double claims, worker rotation and failure on a failed update agent,
against a real TransferQueue; the mode's config checks, enqueue-only
submission with min_weight_version, and resume as a status reset.

…ate_async does
Move _get_n_gpus_for_throughput into StandaloneRolloutMixin so both modes
normalize perf/throughput by trainer + rollout GPUs; decoupled_async divided
by trainer GPUs only, which made its throughput look ~2x higher.

With min_version_lag > 1, an agent that had loaded nothing (version -1) skipped
version 0 as too small a lag, and the trainer's startup wait timed out.

- Pin slot and mirror host buffers only when an accelerator is available;
pinning fails on CPU-only machines (cpu_unit_tests).
- Fence device-to-host copies before publishing: with host slots (the
default) the copies from trainer GPU tensors are asynchronous, so a version
could be announced before its bytes landed.
- Release the reader lease when a read fails, so the publisher does not wait
out the lease before reusing the slot.
- Use one age for off-policy control in decoupled_async: eviction, its
metrics and sample()'s assertion now all use the weight version a group was
generated on (enqueue step elsewhere), so a prompt that waited in the queue
and then ran on fresh weights is no longer rejected by the assertion.
- Wait for every replica to serve the newest version before validation,
which bypasses the dispatcher; wait_for_version makes the update agent load
that version even below min_version_lag.
- Give decoupled_async its own config comment and restore separate_async's.

A focused manager-level prerequisite is now available at #8542. It defines the strong-sync versus publish/commit lifecycle contract and keeps centralized rollout orchestration; this is intended as a base for the broader rollout-driven transport and trainer work in this PR, not a competing implementation.
…llout commit (#8542)
### What does this PR do?
Adds two explicit parameter-synchronization modes to
`CheckpointEngineManager`:
- Coupled strong synchronization (`support_publish_weights=False`, the
default) preserves the existing NCCL/NIXL behavior and returns only
after rollout commits the weights.
- Decoupled publish/commit (`support_publish_weights=True`) lets the
trainer return after publishing an immutable snapshot while rollout
commits that version on the manager's background event loop.
The manager serializes versions by waiting for the previous rollout
commit before publishing the next one, restores sender metrics, and
documents both lifecycle orderings. A test-only D2H backend models
trainer GPU-to-host publication followed by asynchronous rollout reads.
This is foundational work for
[#8526](#8526), not a parallel
implementation of its trainer mode. This PR only defines and tests the
manager-level publish/commit contract while retaining centralized
rollout lifecycle management; #8526 adds the production pull transport,
rollout-side update agent, prompt dispatcher, and decoupled trainer, and
is expected to build on this focused API.

### API and Usage Example
Checkpoint engines whose trainer-side publication owns an immutable
snapshot opt into early return:
```python
class HostSnapshotCheckpointEngine(CheckpointEngine):
support_publish_weights = True
```
Existing coupled transports require no change and continue using
`support_publish_weights=False`.
### Design & Code Changes
- Introduce `WeightUpdateTicket` with separate trainer-published and
rollout-committed completion points.
- Keep `CheckpointEngineManager.update_weights()` compatible with both
awaited and synchronous callers through `@auto_await`.
- For coupled transports, quiesce rollout and release KV cache before
topology construction and trainer send, then wait for rollout commit
before returning.
- For publish-capable transports, return after trainer publication while
rollout abort/release, receive, finalize, and resume run in the
background.
- Restore merged trainer synchronization metrics for both modes.
- Add a test-only D2H backend backed by an immutable CPU snapshot and
Ray actor, manager ordering tests, and vLLM workflow coverage.

What does this PR do?
Adds
decoupled_async, a v1 trainer mode in which the trainer never drives rollout. The trainer only publishes weight versions and enqueues prompts in TransferQueue. Each vLLM replica pulls new versions with one-sided reads and decides on its own when to load them, and a rollout-side dispatcher starts enqueued prompts once replicas have the weights they require. In
separate_asynctoday, every step ends withCheckpointEngineManager.update_weights: abort all requests, release KV, build a topology, push weights, resume. The trainer waits for it and every replica pauses at once. Indecoupled_asyncthe trainer's per-step weight work is a copy into a host slot; replicas prefetch while generating and pause only to load (~1 s at 0.5B, ~1.5 s at 8B).Design doc:
docs/advance/decoupled_weight_sync.md.Related work and why this is not a duplicate. #8395 (
sharded_nixl) moves only each rollout rank's TP/EP slice with NIXL writes, but stays trainer-pushed insideCheckpointEngineManager. #8395's slice planning is the natural next step for sharded pulls on top of this.Checklist Before Starting

Before the prompt dispatcher existed (weights pulled, prompts pushed by the trainer), 1.8–2.0 versions per trajectory were typical because prompts dispatched right after a publish were aborted and re-prefilled. Performance is not optimized yet: at 8B a replica update (full-copy pulls through host memory, ~6.3 s) is longer than a training step, so prompts wait for it; the NCCL baseline moves the 16 GB in 1.35 s.
min_version_lag=2does not help (5.60 s per step), and admitting prompts on older weights would only get them aborted by the next update. Sharded pulls are the fix and are left for a follow-up; the goal here is separating rollout from the training loop.API and Usage Example
