[dist, trainer, config, docs] feat: add MindSpeed-style async activation offload - #965
Conversation
…ion offload Stream-based D2H/H2D activation offload with prefetch, applied before FSDP2 so hooks sit outside gradient-checkpoint boundaries. Complements sync enable_activation and is opt-in via enable_async_activation. Co-authored-by: Cursor <cursoragent@cursor.com>

The new training_context.py / singleton.py / module_match.py are currently only used by async offload (TrainingContext is written but never read). Please keep them private inside async_offload.py until a second real consumer appears.

Cursor review — needs changes
Baseline: main@1f586482f200 · ahead 6 · behind 9. Please rebase — nine commits is enough drift that the BaseTrainer and arguments_types.py hunks are worth re-verifying. Also note the overlap with your own #964 (docs/usage/arguments.md, veomni/arguments/arguments_types.py) and #994 (arguments.md, arguments_types.py, trainer/base.py); merge order will decide who rebases.
Before the detail: there is a duplicate. #872 ("[perf] feat: Add Aysnc Activation Offload") implements the same feature, adding veomni/distributed/async_offloading.py against this PR's veomni/distributed/async_offload.py, and touching the same veomni/utils/device.py, veomni/trainer/base.py and .agents/knowledge/architecture.md. These cannot both land — two modules one character apart would be a maintenance trap. Worth aligning with the other author and the maintainers on which implementation to carry forward before investing more review effort on either.
1. Does it solve a real problem?
Yes. Synchronous activation offload serializes D2H on the compute stream; a stream-based swap with prefetch is the standard way to hide that, and putting saved_tensors_hooks outside the GradientCheckpointingLayer boundary so _NoopSaveInputs routes hidden_states through pack is the correct insight (the docstring explaining this is the best documentation in the PR).
What blocks me is that the correctness- and performance-critical parts are unvalidated and carry concrete hazards:
- No numerical or memory evidence. The Verification section lists
py_compile,ruffand 6 CPU unit tests, and defers hardware validation. This feature rewrites the autograd saved-tensor path and callsstorage().resize_(0)on live activations; without a loss-parity run against baseline and a peak-memory before/after, there is no way to tell whether it saves memory or silently corrupts gradients. A single-device GPU test asserting gradient equality with offload on/off would also make this reviewable in CI. - Slice tensors share storage with other live tensors (inline comment).
wait_d2h_finishedcallsself.tensor.storage().resize_(0)even whenis_slice_tensoris true, which frees the whole underlying allocation, not just this view. - A pinned host buffer is allocated per saved tensor per layer per step (inline comment).
cudaHostAllocis slow and pinned memory does not come back to the allocator cheaply; this cost lands directly in the path the PR is trying to speed up. OffloadManageris a process-wide singleton whose epoch boundary is inferred fromlayer_idx == 0 and len(items) == 0. If a step raises between pack and unpack, itemskeeps stale entries, the reset never fires again, and_block_tensor_numsgrows without bound..agents/knowledge/constraints.md§25 documents this exact hazard class for shared module-level state. The DPO reference model happens to be safe (text_dpo_trainer.py:344runs it undertorch.no_grad(), sopacknever fires), but that is luck rather than design — a manager scoped per model, or an explicit reset on step boundaries, would be sturdier.- Interaction with chunk loss is unaddressed. Your #964 exists precisely because
chunk_lossinstalls its ownsaved_tensors_hooksand did not compose with activation offload. The same nesting question applies here, and nothing in this PR or its tests covers it.
2. Comments / docs / tests
- Docs are in good shape:
docs/usage/arguments.mdgains both fields with the glob/{*}semantics spelled out, and.agents/knowledge/architecture.mdrecords the new module. - The tests cover config validation, segment-aware globbing,
{*}expansion,_no_split_modulesauto-discovery, fail-closed behaviour, and theGetCntkey-collision fix (nice touch documenting the upstream bug). They cover none of the actual swap machinery —SwapTensor, prefetch ordering, or the patched__call__— which is where the risk lives. torch.Tensor.storage()is deprecated in favour ofuntyped_storage(); given the torch version VeOmni pins this will start emitting warnings and eventually break.torch.compilecompatibility should be stated explicitly. A patched__call__plusstorage().resize_()will at best graph-break.
3. Cleanliness / conflicts with main
- Global class mutation (inline comment):
_patch_class_callrewritescls.__call__on e.g.Qwen3DecoderLayerfor the whole process with no way to undo it, and correctness relies on FSDP2's dynamically createdFSDP<Cls>subclass inheriting the patched__call__. Assigning a per-instance subclass instead confines the change to the selected modules. - Dead and misleading code carried over from MindSpeed:
put_npu_tensor/pop_npu_tensor/npu_itemare never used, anddel_npu_tensordoes not delete anything — it waits for D2H completion and frees device storage. In a device-agnostic module (the new helpers correctly go throughget_torch_device(), per constraints §23) thenpu_prefix is doubly confusing. SwapTensor.wait_d2h_finishedsetsstat = "host"when it is already"host", so the state machine cannot distinguish "copy in flight" from "device storage freed". A third state would make the invariants checkable.from contextlib import nullcontextinside_build_training_contextshould be a module-level import.get_offload_moduleslogs a skipped{*}pattern at info level and continues, whileapply_async_activation_offloadfails closed on a fully unmatched plan. A mistyped prefix should at least warn.
Verdict
Needs changes. The design insight and the documentation are strong, but this needs the duplicate with #872 resolved first, then loss-parity plus peak-memory evidence, the slice-tensor resize_(0) hazard fixed, the pinned-buffer allocation pooled, and the global class patch scoped to the selected instances.

@Coach257 I addressed the correctness and lifecycle issues raised by the latest Cursor review in
I did not add a custom pinned-buffer pool without profiling data because PyTorch already uses a caching pinned-memory allocator; I would prefer to measure allocation/throughput behavior before adding another allocator layer. #965 is the implementation we are carrying forward; #964/#994 can be rebased afterward if needed. Could you please review the updated implementation? |

It still fails on The latest head does include the other Cursor hardening: private/dense storage checks, pooled host buffers, per-model manager reset/lifecycle handling, instance-local patching, and CUDA numerical/peak-memory parity coverage. The open overlap with PR #872 also still needs an explicit merge decision before either implementation is merged. Please re-review after the device-check and overlap decision are addressed. |

PyTorch can invoke saved-tensor unpack more than once; skip manager.clear and prefetch unless the swap key is still present. Co-authored-by: Cursor <cursoragent@cursor.com>
GPU CI sets expandable_segments:True, so device storage can be larger than numel*element_size. Treat extra bytes as padding for privately owned contiguous tensors instead of skipping offload. Co-authored-by: Cursor <cursoragent@cursor.com>

resize_(0) runs on the host thread, so a stream wait_event is not enough. Also reject non-zero storage offsets so padded owners stay eligible while views sharing a prefix are skipped. Co-authored-by: Cursor <cursoragent@cursor.com>
Tensor.set_() aliases can share StorageImpl with _base is None and offset 0. Unbind via set_ to a placeholder instead of resize_(0), and restore from a fresh allocation on H2D. Co-authored-by: Cursor <cursoragent@cursor.com>
GPU CI failed because Linear saves a view of hidden_states, so the host pool stayed empty. Clone matching views for offload, and use checkpoint in the peak test so production packing is actually exercised. Co-authored-by: Cursor <cursoragent@cursor.com>
NPU unit already passed unpack-twice on cee8474 and then died on peak-memory allocations==0. Checkpoint must wrap the layer __call__, matching production, so hidden_states are packed on Ascend Linear. Co-authored-by: Cursor <cursoragent@cursor.com>

GPU unit failed after the Coach257 train_step move because the VLM compile stub had no _reset_async_activation_offload_if_enabled. Co-authored-by: Cursor <cursoragent@cursor.com>
Keep the VLM compile stub's async-offload reset and the aux_metrics 3-tuple from ByteDance-Seed#1110 so GPU unit can run on a mergeable PR. Co-authored-by: Cursor <cursoragent@cursor.com>
GPU/NPU unit tests failed in test_aux_metrics because the stub accelerator has no offload_config. Missing config means async offload is off. Co-authored-by: Cursor <cursoragent@cursor.com>
GPU/NPU unit died at test_aux_metrics because pytest -x stops at the first missing stub field. Resolve offload_config once with disabled defaults and use it for train_step reset, parallelize, and training-context setup. Co-authored-by: Cursor <cursoragent@cursor.com>
### What does this PR do? ByteDance-Seed/VeOmni#965

Summary
Port MindSpeed-MM-style asynchronous activation offload into VeOmni: stream-based D2H/H2D activation swaps with prefetch, wired through
OffloadConfigandBaseTrainer. This complements the synchronous activation-offload path and the chunk-loss compatibility work in #964. Async offload applies per-module hooks before FSDP2 sharding so the offload context sits outside gradient-checkpoint boundaries.
What changed
