Purpose

Related to #48680.

Weight loading currently forces max_split_size_mb=20 for both the default CUDA caching allocator and the CuMem allocator used by sleep mode. The limit helps the default allocator avoid pinned split remainders, but it has the opposite effect inside a live torch.cuda.MemPool: differently-sized conversion buffers cannot reuse larger cached blocks, while the pool cannot reclaim fully free segments under pressure (pytorch/pytorch#159674). Those buffers remain stranded until the pool context exits and can OOM model loading first.

This revision preserves the default/user allocator split policy when CuMem is enabled, allowing the live pool to reuse varied conversion buffers. Non-CuMem loading retains the existing 20 MiB policy.

It also reduces the separate FlashInfer TRTLLM NVFP4 MoE conversion peak by preallocating final W13/W2 weight and scale tensors, writing weight permutations with torch.index_select(..., out=...), and reusing scale scratch buffers instead of retaining per-expert result lists followed by four torch.stack copies.

This is not a duplicate of #45589: that change addressed the FlashInfer TRTLLM BF16 MoE conversion path. This Draft covers the general CuMem load allocator policy plus the ModelOpt NVFP4 TRTLLM conversion path.

AI assistance (OpenAI Codex) was used; the submitter reviewed the resulting changes.

Test Plan

Test Result

  • .venv/bin/python -m pytest tests/v1/worker/test_gpu_worker.py tests/kernels/moe/test_flashinfer_fp4_moe_utils.py -q: 10 passed.
  • Ruff check and format checks passed.
  • Applicable pre-commit hooks passed: Ruff, mypy, SPDX, configuration validation, forbidden-import checks, and DCO sign-off validation.
  • actionlint was skipped because no workflow files changed.
  • Python compilation and git diff --check passed.
  • The TRTLLM NVFP4 conversion produces byte-for-byte identical outputs and a synthetic Nemotron-like shape reduced measured transient peak allocation from 0.996 GiB to 0.793 GiB (20.4%).

SM120 validation history

  • Previous head 92dade3b1: still OOMed on 2x RTX 5070 Ti in the non-TRTLLM padding branch at prepare_nvfp4_moe_layer_for_fi_or_cutlass. This showed that the TRTLLM-only conversion optimization did not address the reporter's active backend.
  • Revised head c6434f496: preserves allocator split/reuse under CuMem and is pending a rerun of the same reproduction.

This Draft must pass the original SM120 reproduction and a basic inference correctness check before it is marked ready.

@JasonVranek, could you please validate this Draft on the SM120 setup from #48680? In particular, please check that the NVFP4 model loads with --enable-sleep-mode using the original reproduction configuration, and that a basic inference request returns correct output. The branch is hubunt:fix/nvfp4-sleep-mode-load-oom. Once that validation is available, this PR can be marked ready and a reviewer can trigger the full CI run.

Validated hubunt:fix/nvfp4-sleep-mode-load-oom on the SM120 setup from #48680 (2x RTX 5070 Ti 16GB, driver 595.71.05, vLLM 0.25.0 base, torch 2.11.0+cu130, flashinfer 0.6.13). Method: the PR is Python-only, so I overlaid the branch's flashinfer_fp4_moe.py onto the 0.25.0 install and ran the original reproduction configuration from #48680 (nvidia/Nemotron-3-Nano-30B NVFP4/modelopt, TP=2, --gpu-memory-utilization 0.85, --max-model-len 262144, --enable-sleep-mode, VLLM_USE_FLASHINFER_MOE_FP4=1, throughput MoE backend).

Result: the load still OOMs with --enable-sleep-mode. Same signature as #48680:

torch.OutOfMemoryError: CUDA out of memory. Tried to allocate 168.00 MiB. GPU 0 has a total capacity of
15.47 GiB of which 176.38 MiB is free. ... 14.51 GiB is allocated by PyTorch, with 4.85 GiB allocated in
private pools (e.g., CUDA Graphs) ...
  File ".../flashinfer_fp4_moe.py", line 373, in prepare_nvfp4_moe_layer_for_fi_or_cutlass

Notes that may help:

  • The failing frame is at line 373 of the PR's version of the file (379 lines vs the base's ~340), i.e. inside the reworked prepare_nvfp4_moe_layer_for_fi_or_cutlass — confirming the branch code was active, and that the chunked swap / preallocate+index_select(out=) rework is being exercised.
  • The failure is now a small allocation (168 MiB) against a card already holding 4.85 GiB in the cumem private pool — consistent with [Bug]: --enable-sleep-mode OOMs loading an NVFP4 (modelopt) 30B on 16GB SM120 cards where the identical model loads fine without it — cumem MemPool overhead, not resolved by raising max_split_size_mb #48680's finding that on 16 GiB the dominant cost is the absolute private-pool overhead of the sleep-mode allocator on this path, rather than per-op transient peaks. The PR's transient reductions look correct and probably help on larger cards, but on 16 GiB the pool overhead alone still pushes the load over the edge.
  • Sanity check: with the PR file and --enable-sleep-mode removed, the identical configuration loads and serves correctly (verified with completions) — the branch does not regress the normal path on this setup.
  • Both TP workers fail identically (GPU0/GPU1), so it is not a rank asymmetry.

Happy to re-run with additional instrumentation or try follow-up commits on this hardware.

@JasonVranek, thank you for the detailed validation. The line-373 traceback shows that this reproduction is taking the non-TRTLLM padding branch; the current commit optimized the TRTLLM static-weight conversion, so it did not address the allocation that failed in your run. I have updated the Draft description to record the failed result and am revising the fix around the CuMem-pool loading policy. I will send a specific commit/config for another run once the revised tests are ready.

Preserve the default allocator split policy while loading through CuMem so varied conversion buffers can be reused inside the live MemPool. Also preallocate final TRTLLM NVFP4 MoE outputs to avoid per-expert result lists and stack copies.

@JasonVranek, the revised head is now c6434f49635437d7590297f7da7b7ed05eee723d, rebased on current main. Please rerun the same #48680 configuration with this head. The new change leaves max_split_size_mb at its default/user setting for CuMem loading, rather than forcing 20 MiB; no reproduction flags need to change. Please report whether loading completes and, if so, whether a basic completion succeeds. If it still OOMs, the free/private-pool figures and failing frame will determine the next step.

Following up from the validation runs above: we kept instrumenting on the #48680 rig and eventually landed a working fix — #49151. Per-module tracing showed the dominant term wasn't the conversion transients but the pool itself: the NVFP4 conversion replaces each layer's weights with slightly larger tensors inside the live MemPool, which can neither release emptied segments nor reuse freed blocks for bigger requests, stranding ~5 GiB. The fix loads and converts outside the pool entirely, then re-homes the finished weights into it storage-by-storage.

Wanted to say: this PR's revisions were genuinely what got us there — isolating the TRTLLM branch and then the max_split policy let us falsify the transient hypotheses one by one on hardware until the ratchet was the only mechanism left standing. Thanks for the careful iterations. Validated end-to-end on the #48680 config (load, generate, sleep 14.3→2.1 GiB/GPU, wake, byte-identical output); details and probe evidence in #49151 — happy to consolidate into whichever PR the maintainers prefer.
