What does this PR do?

With BF16 logits, forward_kl_topk_tail can compute a negative student tail mass and reverse the logit gradient when use_chunked_topk=True. For logits [0, 0, -9, -9] and teacher probabilities [0.45, 0.45, 0.05, 0.05], rounding the selected log-probabilities back to BF16 changes their mass from 0.9998766 to 1.0017425. The tail clamp then removes its gradient. On CPU, the resulting gradient cosine against an FP64 reference is -0.9999976.

Keep the selected log-probabilities in FP32 for tail-KL. The chunked helper accepts an optional output dtype, including for empty inputs; its default behavior stays unchanged. The non-chunked tail path also explicitly requests FP32 log_softmax, so it does not depend on autocast. The chunked path still casts only one vocabulary chunk at a time; the retained [B, T, K] output uses FP32. The existing return-dtype description is updated.

Checklist Before Starting

Additional local checks using the public compute_forward_kl_topk entry point passed 60 loss/gradient cases each on CPU, CUDA, and CUDA with BF16 autocast. These cover BF16/FP16/FP32 inputs, both paths, multiple chunk sizes, concentrated distributions, mismatched teacher/student supports, and full-vocabulary support. Gradients were compared against an independent FP64 coarse-grained KL. The minimum cosine after the fix was above 0.999997; 24 ordinary top-k KL cases had bitwise-identical outputs and gradients before/after the change. Empty helper outputs were checked for four input dtypes.

Environment: PyTorch 2.13.0+cu130, NVIDIA RTX A1000 Laptop GPU. No end-to-end model training run.

Minimal BF16 regression reproducer

Run from the repository with its dependencies installed. It fails on the unfixed source and passes with this patch.

from types import SimpleNamespace
import torch
from verl.trainer.distillation.fsdp.losses import compute_forward_kl_topk

for chunked in (False, True):
    logits = torch.tensor(
        [[[0., 0., -9., -9.]]], dtype=torch.bfloat16, requires_grad=True
    )
    teacher_logprobs = torch.nested.nested_tensor(
        [torch.tensor([[0.45, 0.45]]).log()], layout=torch.jagged
    )
    teacher_ids = torch.nested.nested_tensor(
        [torch.tensor([[0, 1]])], layout=torch.jagged
    )
    config = SimpleNamespace(distillation_loss=SimpleNamespace(
        use_chunked_topk=chunked,
        chunked_topk_chunk_size=1,
        log_prob_min_clamp=None,
        tail_mass_eps=1e-6,
    ))
    out = compute_forward_kl_topk(
        logits, teacher_logprobs, teacher_ids, config, "thd", include_tail=True
    )
    grad = torch.autograd.grad(out["distillation_losses"].sum(), logits)[0]
    assert 0.9998 < out["student_mass"].item() < 1.0
    assert (grad[..., :2] > 0).all() and (grad[..., 2:] < 0).all()
    print(chunked, out["student_mass"].item(), grad.tolist())

API and Usage Example

No configuration changes. The precision change applies when include_tail=True; ordinary top-k KL keeps its existing behavior.

Checklist Before Submitting

  • Read the contribution guide.
  • Run pre-commit checks on the changed file.
  • Update the existing helper's return-dtype description.
  • Add a CI regression test. Test files are unchanged in this source-only fix; the reproducer above and the additional local checks cover the reported failure.
  • Request maintainer CI approval through ci-request.

Summary

Summary by CodeRabbit

  • Bug Fixes
    • Improved numerical precision in top-k forward KL calculations when the tail is included.

The top-k log-probability helper now accepts an output dtype. The forward KL calculation requests fp32 log probabilities when include_tail is true. Otherwise, both paths retain their default dtype behavior.

Changes: Top-K Forward KL

Layer / File(s) Summary
Select output dtype for top-k log probabilities
verl/trainer/distillation/fsdp/losses.py
_chunked_topk_log_probs accepts an optional output dtype and defaults to the logits dtype. When include_tail is true, the chunked and standard log-probability paths request fp32 output.

Merge Risk: Moderate · up to b6dc6

The FP32 tail-KL fix is incomplete for the chunked top-k path. When the student is very confident in its top token, the tail term can still hit its floor and lose its gradient. Compute the chunked selected log-probabilities with a per-chunk log_softmax, or from max-shifted logits, before merging.

Explanation

The title states the main change: selected log-probabilities stay in FP32 for tail-KL, which matches the summary's changes to _chunked_topk_log_probs and compute_forward_kl_topk. It also follows the module/type format the description mentions. The title is short and specific.

Full details: Description check

Explanation

The description explains the bug: BF16 rounding of selected log-probabilities makes the student tail mass negative and reverses the logit gradient when use_chunked_topk=True. It states the fix, which adds an optional output dtype to _chunked_topk_log_probs and requests FP32 output in compute_forward_kl_topk when include_tail is true. It also gives a reproducer and test results, and it matches the raw summary.

Docstring coverage is 100.00% which is sufficient. The required threshold is 80.00%. Docstring coverage is scoped to functions touched by this diff with cyclomatic complexity of at least 2. Documentation-only edits and deletions within surviving functions are included; unchanged diff context and fully deleted functions are excluded. Analyzed 2 functions across 1 files.

Major · Functional Correctness · Quick win

Avoid cancellation in the chunked normalization.

This pre-existing calculation still defeats the new FP32 tail path. For BF16 logits [64, 51], logsumexp rounds to 64 in FP32, so the selected log-probability becomes zero. The true student tail is about 2.26e-6, above the default 1e-6 floor, but the computed tail hits the floor and loses its gradient. PyTorch adds the maximum back before returning logsumexp. (raw.githubusercontent.com)

Compute the selected log-probabilities from max-shifted logits, or use FP32 log_softmax per chunk.
