[KK] b12x MoE: opt-in NVFP4-activation prefill for W4A16 experts, decode rows stay W4A16

Canonical twin of #970 (merged into the Karmic beta as 3c6c8e44), the same commits on dev/karmic-kraken; the only conflict was the import block. It needs the b12x A4 prefill on master: local-inference-lab/b12x#474 (twin of b12x#472); without it B12X_W4A16_A4_PREFILL_MIN_TOKENS has no effect and nothing changes.

With B12X_W4A16_A4_PREFILL_MIN_TOKENS set, this PR:

  • passes the checkpoint's activation global scales to b12x in W4A16 mode (1/w13_input_scale reduced to the smallest global scale, 1/w2_input_scale per expert); layers without valid scales stay W4A16 only;
  • splits a mixed step so its leading decode rows (query length <= 4, decodes first) always run on the exact W4A16 path and only the prefill rows take the NVFP4-activation path. Decode-only steps (CUDA graphs) never reach the split.

Evidence (Karmic beta, GLM-5.3-Flash stored QAD CSF checkpoint, TP2/DCP2 MTP3, 2x RTX PRO 6000 Max-Q, threshold 1536): prefill 8K/32K 7490/7728 -> 9528/9784 tok/s (+27%), decode unchanged; needle-checksum near misses 0.53% (W4A16) vs 1.75% (A4).

Tests: tests/kernels/moe/test_b12x_a4_prefill.py 10 passed (this branch's b12x.py in the beta image, CPU); ruff clean. The release fragment is byte-identical to the beta one, so a later canonical-to-beta sync does not touch a published fragment.

Also carries #976 (merged into the Karmic beta as be03c271), cherry-picked unchanged with its fragment: ModelOptNvFp4FusedMoE now zero-initializes w13_input_scale/w2_input_scale. W4A16_NVFP4 layers such as GLM-5.3's MTP experts store no input scales, so they kept uninitialized memory, and a positive garbage value enabled this A4 prefill for the draft layer with a meaningless global scale (5.2e-32 in a GLM Spark TP2 run). Zero reads as absent and the guard keeps those layers on W4A16. tests/quantization/test_modelopt.py::test_modelopt_nvfp4_moe_input_scales_start_at_zero fails without the change and passes with it (beta image, one RTX PRO 6000).

Also carries #977 (merged into the Karmic beta as ad3743e3), cherry-picked unchanged with its fragment: the A4 prefill is chosen by row type, so decode and MTP verification rows run W4A16 and prefill rows run A4, whatever the step size; captured CUDA graphs stay W4A16. It needs b12x#476 (in the master twin b12x#474). glm53-tp2: a 1,154-token prompt prefills at 6,498 instead of 5,868 tok/s, 8K/32K prefill and decode are unchanged, needle-checksum 492/492/490 vs 490/492/497. tests/kernels/moe/test_b12x_a4_prefill.py 15 passed.

Summary by CodeRabbit

  • New Features
    • Added opt-in W4A16 MoE prefill quantization for GLM-5.3-Flash, configurable with a token threshold. Eligible prefill rows use A4; decode rows and layers without valid activation scales retain W4A16.
  • Bug Fixes
    • MoE activation scales without stored values now initialize to zero, so they’re treated as unavailable and affected layers remain on W4A16.

…ows stay W4A16

With B12X_W4A16_A4_PREFILL_MIN_TOKENS set, b12x serves W4A16 MoE calls of at
least that many tokens with NVFP4 activations over the packed W4A16 weights.
vLLM now passes the checkpoint's activation global scales in W4A16 mode for
that path (the shared input scale is the smallest global scale, i.e. the
widest calibrated range; intermediate scales stay per expert), skips layers
whose scales are missing or invalid (they stay W4A16), and splits a mixed
step so its leading decode rows always run on the exact W4A16 path and only
the prefill rows take the faster one.

📝 Walkthrough

Walkthrough

B12X experts gain opt-in W4A16 A4 prefill support. The implementation reads a configurable threshold, prepares activation scales when valid, and routes leading decode rows separately from prefill rows outside CUDA graph capture. ModelOpt MoE input-scale parameters now initialize to zero. Host-side tests cover these behaviors.

Changes

B12X W4A16 A4 Prefill

Layer / File(s) Summary
MoE input-scale initialization
vllm/model_executor/layers/quantization/modelopt.py, tests/quantization/test_modelopt.py, .lil/changes/vllm-nvfp4-moe-unloaded-input-scales.json
Initializes both MoE input-scale parameters to zero. Tests cover NVFP4 and W4A16_NVFP4 weight creation. The release record describes behavior when activation scales are absent.
Threshold and activation-scale setup
vllm/model_executor/layers/fused_moe/b12x.py, tests/kernels/moe/test_b12x_a4_prefill.py, .lil/changes/vllm-b12x-w4a16-a4-prefill.json
Adds a nonnegative environment-configured threshold and leading decode-row detection. For enabled A4 prefill, the layer prepares activation scales when both scale sets are valid. Quant-config refresh loads the required scales. Tests cover threshold values and decode-row detection.
Decode and prefill batch routing
vllm/model_executor/layers/fused_moe/b12x.py, tests/kernels/moe/test_b12x_a4_prefill.py, .lil/changes/vllm-b12x-a4-prefill-row-type.json
Outside CUDA graph capture, eligible W4A16 batches use W4A16 for leading decode rows and A4 for remaining prefill rows. Tests cover mixed, prefill-only, decode-only, captured-stream, and ineligible cases.

Merge Risk: 🔵 Low · up to 4dc4d

The feature is opt-in and the remaining issues are minor. A malformed B12X_W4A16_A4_PREFILL_MIN_TOKENS value could raise an error during the forward pass instead of leaving the feature off. With sequence-parallel MoE, some prefill rows may also miss the A4 speedup. Both are worth fixing but do not block merging.

Security Architecture Review

Security architecture risk: 🔵 Low · up to 4dc4d

The change is opt-in and retains the existing execution path in several cases. The main uncertainty is whether its decode-preservation guarantee holds across supported batching configurations. No new unauthorized-access path was established, but incomplete failure and deployment coverage prevents a minimal-risk assessment.

Retained concerns

  • Low · architecture · inferred: The decode-preservation guarantee depends on a batch-ordering contract that A4 eligibility does not enforce. Unrecognized metadata yields zero protected decode rows, and prefix-only detection cannot protect decode rows after a prefill. Production reordering is conditional, although GDN requests it explicitly. Consequently, eligible eager callers outside the proven ordering contract may route decode rows through A4. This is execution-control drift, not a verified unauthorized-access or cross-request disclosure finding.
Security review details

Security Blast Radius

  • inferred — The evidenced impact is computation within eligible inference workers and their prepared experts. Matching row slices provide counterevidence against newly introduced row-ownership mixing. No new cross-service authority transfer or independently attackable endpoint was established by the inspected invocation path.

Security Findings and Attack Paths

  • observed — The canonical Security section supplies no retained findings or verifier candidates and explicitly reports unknown coverage. The routing-contract concern is therefore not classified as a verified security exploit, and empty finding lists are not treated as proof of complete safety.

Trust Boundaries and Controls

  • inferred — Selection depends on deployment configuration, loaded calibration scales, and internally produced attention metadata. Request scheduling can influence batch composition, but direct external authority over metadata or the environment gate was not established. Scale validation protects against invalid calibration values; it does not validate the metadata ordering contract.

Resilience and Maintainability Implications

  • observed — Preparation is rejected during graph capture, loaded activation scales are marked immutable, and prepared-object replacement invalidates cached plans. These checks support lifecycle consistency. Concurrent preparation versus execution and external asynchronous failure recovery remain outside the hydrated evidence.

Hardening Proposals

  • proposed — Make A4 eligibility depend on an explicit producer-supported row-order contract, or preserve whole-batch W4A16 when metadata cannot establish a safe partition. This would make the precision-control fallback conservative without implying a verified security vulnerability.

🩺 Stability & Availability | 🟡 Minor | ⚡ Quick win

Handle a non-integer B12X_W4A16_A4_PREFILL_MIN_TOKENS value.

int() raises ValueError for a value such as 1.5k or true. The function runs inside apply on every MoE call and inside _prepare_experts. A typo in the environment variable therefore crashes the forward pass instead of disabling the opt-in. It also re-reads and re-parses os.environ on every call in the hot path.

Parse the value once with a safe fallback and log a warning on bad input.

+ return 0

If you cache the result, the tests must call b12x._w4a16_a4_prefill_min_tokens.cache_clear() after each monkeypatch.setenv. Add import functools to the file.

🎯 Functional Correctness | 🟡 Minor | ⚡ Quick win

The decode-row count reads only the first attention metadata entry.

The loop breaks after the first metadata value that has query_start_loc. This is correct only if all layers share the same batch layout. The tolerance hi - lo <= 4 is also hard-coded for 1+3 MTP tokens. With a different num_speculative_tokens, speculative decode rows with a longer query length count as prefill rows, so they run on the A4 path. Derive the limit from the speculative config, or document the MTP3 restriction at the environment variable.

W4A16_NVFP4 experts store no input scales (GLM-5.3-Flash keeps its MTP
layer's routed experts weight-only), so the registered parameters kept
whatever torch.empty returned. With B12X_W4A16_A4_PREFILL_MIN_TOKENS set,
the b12x MoE takes positive finite input scales for calibrated ones, and
the draft layer could run its prefill with NVFP4 activations under a
garbage global scale (5.2e-32 in a GLM Spark TP2 run). Zero reads as
absent: the existing guard keeps such layers on W4A16.

With B12X_W4A16_A4_PREFILL_MIN_TOKENS set, the decode rows of a step run
W4A16 and its prefill rows run A4, whatever the call size (b12x
bind(a4_prefill=...)). Before, prefill rows took A4 only when the call had at
least the threshold's tokens, so a prompt's precision depended on how the
scheduler chunked and batched it. A captured CUDA graph keeps W4A16 for all
its rows, and layers without activation scales (the MTP draft layer) are not
split at all.

A GDN/KDA layer counts prefills on the host, so a decode-only step finds its
decode rows without a device read; steps with prefill rows read
query_start_loc once, as before.

Translate the decode-row boundary to each sequence-parallel shard.

When a mixed batch uses sequence-parallel MoE with the B12x W4A16/A4 path, _num_leading_decode_tokens caches the full-batch decode prefix from query_start_loc. Qwen3Next chunks hidden states by TP rank, then passes rank-local rows to the MoE. On nonzero ranks, min(cached_rows, tokens) can classify prefill rows as decode, so those rows stay W4A16 instead of using A4. Compute the overlap between the decode prefix and each rank’s padded chunk before splitting, or disable this split for sequence-parallel calls.

Update _num_leading_decode_tokens so its cached decode prefix is translated to
each sequence-parallel rank’s padded chunk before it determines decode rows,
preventing prefill rows on nonzero ranks from being classified as decode;
alternatively, disable this split for sequence-parallel calls.

Closing: superseded by Luke's own port of the hybrid A4 prefill in dev/karmic-kraken (5fbecb0..a13af3f, switched on with B12X_W4A16_A4_PREFILL=1). The beta now uses that port too.
