feat(kda): fused KDA decode for 16/64 heads and the DS conv-state layout - #7132
Conversation
GLM-5.3-Flash has 64 KDA heads, so a rank holds 64 (TP1 / DP attention), 32 (TP2), 16 (TP4) or 8 (TP8) heads. fused_kda_decode allowed 8, 12, 24, 32, 48 and 96 heads, and packed_fused_kda_decode (T>1) 12, 24, 32, 48 and 96. The CuTe DSL kernels only use the head count as a grid extent, so 16 and 64 are added to both allow-lists. fused_kda_decode now also accepts vLLM's dimension-first (DS) conv-state layout, [slots, 3 * H * 128, 3] with strides [slot, 3, 1], which NIXL prefill/decode disaggregation requires. The layout is a compile-time variant of the CuTe DSL kernel (kernel name suffix "_ds"): only the conv-state addressing changes, and a channel's history is loaded and stored per element instead of as bf16x4 vectors. The Cake routes stay SD-only. Validation (local SM120, then VR200): DS output, conv state and recurrent state are bit-identical to SD for 8/16/32/64 heads and fp32/bf16 state; null rows give zero output; untouched slots are unchanged. fused_kda_decode now accepts 16 and 64 heads, but Cake has routes only for 8/12/24/32/48/96 and its selector raises for any other count. With backend="auto" and a state_indices_mode on SM100/SM103, a 16- or 64-head call therefore raised instead of using the CuTe DSL kernel. Return no Cake route when none of the registered variants covers the head count. Also: zip(strict=True) in the DS/SD test (ruff B905) and an if/else for the conv-state compile stride instead of a formatter-split conditional. AI-assisted. …ABI tests The DS conv-state commit added conv_dim_first to _make_compile_inputs and as the last launch constexpr, which broke the compile-ABI test's stub and its flag positions. Update both, and check that SD and DS compile and cache as distinct specializations. AI-assisted. Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com> Signed-off-by: Ao Tang <aot@nvidia.com>
In the DS (dimension-first) conv-state layout a channel's three history taps are adjacent, so the 4 channels x 3 taps one conv thread owns are 12 contiguous bf16 values. Move them as three 8-byte vectors (coalesced across the warp) and transpose in registers, instead of 12 scalar loads and 12 scalar stores per thread. Output and cache state are unchanged (DS stays bit-exact with SD). Both layouts move conv state as 8-byte vectors, so fused_kda_decode now rejects conv_state slots that do not start 8-byte aligned, rather than faulting on a misaligned vector access. AI-assisted. Convolution-cache layout flashinfer/kda_decode.py, flashinfer/kda_kernels/fused_kda_decode.py, tests/kda/test_fused_kda_decode.py |
Fused decode validates SD and DS convolution-cache layouts. For DS, the kernel loads and stores history through contiguous chunks. Tests compare DS results and cache updates with SD and reference results, and check alignment requirements. |
Layout specialization and dispatch flashinfer/kda_kernels/fused_kda_decode.py, tests/kda/test_cake_fused_kda_decode_dispatch.py, tests/kda/test_fused_kda_decode.py |
Compilation specializes on convolution-cache layout. DS requests use the CuTe DSL path. Cake selection returns no variant when no eligibility rule matches. Tests cover dispatch, compile arguments, and kernel-cache names for both layouts. |
Head-count support and packed decode flashinfer/kda_decode.py, flashinfer/kda_kernels/fused_kda_decode.py, flashinfer/kda_kernels/fused_kda_decode_multitoken.py, flashinfer/trace/templates/kda.py, tests/kda/test_fused_kda_decode.py, tests/trace/fi_trace_out/packed_fused_kda_decode_t3_h12_d128.json |
Fused and packed decode and their trace templates accept additional head counts. Tests cover added packed-decode cases, and a trace constraint includes 16 heads. |

fused_kda_decode and packed_fused_kda_decode accept 16 and 64 heads, but their trace templates still listed the old head counts, so a traced GLM-5.3-Flash call would produce a definition whose constraints exclude its own num_heads. Update both templates and the committed packed golden trace, whose constraints are copied verbatim from the template. AI-assisted. fused_kda_decode now requires 8-byte-aligned conv-state slots; say so in its conv_state description. packed_fused_kda_decode's "other tensors follow fused_kda_decode" implied the DS layout also works for T>1, but the multitoken kernel accepts SD only; state that DS is T=1 only. The T>1 validator accepts a view when only the inner SD strides match. A caller can therefore pass
conv_statewithstride(0) < (3 * hidden_size) * (num_tokens + _W - 2). Distinctconv_slotvalues then address overlapping storage, so the kernel's rolling-history writes can overwrite another sequence's cache and change later outputs. Add the non-overlap check for the newly reachable 16- and 64-head paths. The scalar history accesses do not require the direct T=1 path's 8-byte alignment check.Suggested fix

conv_stateviews.The T>1 validator accepts the required shape and inner strides without checking the base pointer or slot stride. GLM-5.3-Flash decodes each KDA layer with three Triton kernels (conv update, recurrence, gated RMSNorm). FlashInfer's fused_kda_decode does all three in one CuTe DSL launch per layer (packed_fused_kda_decode for draft-verify rows), as Kimi K3 already uses. - Plain decode steps, the decode rows of mixed steps and draft-verify rows run the FlashInfer kernels. In a mixed step the conv skips the decode rows (null slots) and the prefill kernel sees only the builder's prefill tail, as the GDN layer peels its decode rows; FlashKDA's prepare kernel no longer scans the decode rows. - Selection follows Kimi K3: additional_config kda_decode_backend / kda_spec_decode_backend (--kda-decode-backend) in auto / flashinfer / triton. auto uses FlashInfer on SM10x when FlashInfer accepts the layer. Supported head counts and conv-state layouts depend on the FlashInfer version and are only checked by its launcher, so one launch on a null row at startup decides (it also compiles the kernel before serving). FlashInfer 0.7.2 accepts 8/32 local heads (TP8/TP2) and the SD layout; 16/64 heads (TP4, TP1/DP attention) and the DS layout need flashinfer-ai/flashinfer#7132. - The fused kernel applies o_norm, so with it _forward returns normed output for every step type (a breakable graph replays the code after _forward as captured, whatever the live step). Kernels (VR200, 34 layers per step in a CUDA graph, L2 flushed): 1.9-2.1x at 1-8 rows, 1.3-1.8x at 32-512 rows vs the Triton kernels; pure decode steps run as one FULL CUDA graph, so this is what they pay. In eager (PIECEWISE) mixed steps the host enqueue also drops (3.0 -> 0.95 ms per 34 layers) and the decode-row peel cuts a 32K-token + 512-row step's KDA layer time by 58% (6.96 -> 2.94 ms at 64 heads). Error vs an fp64 reference equals the Triton path's. Co-Authored-By: Claude Opus 5.5 <noreply@anthropic.com> Signed-off-by: Ao Tang <aot@nvidia.com>

Approving pending CI — DS is a clean compile-time variant that leaves the SD kernel's generated code unchanged, and 16/64 heads only widen grid and stride parameters; thanks for the thorough numbers.
Two non-blocking asks are inline.
I'll start a scoped CI run on the final head before merge.

The launcher accepts conv_state slots that start 8-byte aligned (both
layouts move conv state as bf16x4 vectors), but the kernel was compiled
with assumed_align=16, so the TVM-FFI launch rejected an 8- but not
16-byte aligned base ("Misaligned Tensor data on argument #2"). Compile
conv_state with assumed_align=8 to match the launcher's contract.
Tests (review feedback):
- 8- but not 16-byte aligned conv_state base, SD and DS, matches a
compact aligned one bit for bit (fails before this change);
- misaligned-pointer case in the conv-slot alignment rejection test;
- DS built with the paged slot stride (torch.empty_strided) instead of a
compact .contiguous() copy;
- packed T=1 rows with the DS layout match the direct call and SD.

- Selection follows Kimi K3: additional_config kda_decode_backend / kda_spec_decode_backend (--kda-decode-backend) in auto / flashinfer / triton. auto uses FlashInfer on SM10x when a static check accepts the layer: 8/12/16/24/32/48/64/96 local heads; draft-verify rows 12-96 heads and the SD conv-state layout. - Requires FlashInfer 0.7.3: flashinfer-ai/flashinfer#7132 adds 16/64 heads (TP4, TP1/DP attention) and the DS conv-state layout. - The fused kernel applies o_norm, so with it _forward returns normed output for every step type (a breakable graph replays the code after _forward as captured, whatever the live step). - FlashInfer's [3, width, P] conv weight and fp32 norm weight are built from the fused conv1d parameter and o_norm in process_weights_after_loading and refilled in place on reload. Pure decode steps run the fused kernel in one FULL CUDA graph; eager (PIECEWISE) mixed steps also enqueue fewer kernels, and the decode-row peel keeps one-token rows out of the chunked prefill kernel. Error vs an fp64 reference equals the Triton path's. End-to-end serving results (GB300 and GB200) are in the PR description. 📌 Description
GLM-5.3-Flash has 64 KDA heads, so a rank holds:
The current head allow-lists are:
fused_kda_decodepacked_fused_kda_decode(T>1)The CuTe DSL kernels use the head count only as a grid extent and in layout strides. This PR therefore adds 16 and
64 to both allow-lists.
DS conv-state layout.
fused_kda_decodealso accepts vLLM's dimension-first (DS) conv-state layout:[slots, 3*H*128, 3]with strides[slot, 3, 1]. vLLM's NIXL prefill/decode disaggregation requires DS for Mamba-familystate transfer (
nixl/base_worker.pyasserts it).conv_dim_firstconstexpr, kernel-name suffix
_ds).contiguous, so the 4 channels x 3 taps a conv thread owns are 12 contiguous values. The thread moves them as three
bf16x4vectors (coalesced across the warp) and transposes in registers. The DS kernel's SASS has the sameinstruction count and load/store mix as SD (sm_103a, bf16 state: 816 instructions, no 16-bit stores).
fused_kda_decodenow rejects conv-stateslots that do not start 8-byte aligned, instead of faulting on a misaligned access.
fused_kda_decodeandpacked_fused_kda_decodetrace templates list 16 and 64 heads, andthe committed packed golden trace is updated to match (
pytest tests/trace: the KDA and template-consistency testspass).
Cake fallback for head counts without routes. Cake has routes only for 8/12/24/32/48/96 heads, and its selector
raises for any other count. Without a guard,
backend="auto"with astate_indices_modeon SM100/SM103 would raisefor 16 or 64 heads instead of running the CuTe DSL kernel.
_select_cake_variantnow returns no route when noregistered variant covers the head count.

Tests have been added or updated as needed.
All tests are passing (
unittest, etc.).test_fused_kda_decode_glm_heads_and_ds_layout(new), 16/64 heads × 1–64 rows × fp32/bf16 state:test_packed_fused_kda_decode: adds h16-n4-t3 and h64-n2-t2.test_cake_selector_falls_back_for_heads_without_routes(new): 16/64 heads on sm100a/sm103a return no Cakeroute. It fails on the code without the guard.
Compile-ABI and cache-key tests updated for the
conv_dim_firstflag: SD and DS compile and cache separately.Full
tests/kda, this branch vs main 9ecd6e3 on the same node:The GB200/GB300 full runs predate the compile-ABI test update and failed only that test. Rerunning
test_fused_kda_decode.pyandtest_cake_fused_kda_decode_dispatch.pyafter that update passes onGB200 and GB300 (375 passed each).
After the vectorized-DS and alignment-check change (the later commits change only trace metadata and docstrings),
test_fused_kda_decode.py,test_cake_fused_kda_decode_dispatch.pyandtest_fused_kda_decode_dispatch.py: 2430 passed on both VR200 and GB300(main: 2412 passed).
GB200, the same three files plus
test_cake_fused_kda_decode_gpu.pyandtest_packed_fused_kda_decode_api.py:2613 passed (main: 2595 passed).
The vLLM layer tests that drive both APIs at 16/32/64 heads, SD/DS and fp32/bf16 pass on VR200 (175 passed, run
against an earlier revision of this branch with the same API surface).
🔬 Experimental Track
flashinfer/experimental/and/or an@flashinfer_experimental_api. Tracking issue: #tests/experimental/and were validated on the intended hardware; a runnable example is included.flashinfer/aot.py, and no experimental backend is reachable frombackend="auto"withoutFLASHINFER_ALLOW_EXPERIMENTAL_AUTO_BACKENDS=1. (Calling an@flashinfer_experimental_apior naming a backend explicitly is itself the opt-in and needs no environment variable.)Reviewer Notes
no occupancy risk; the multitoken tile choice depends only on sequences x heads. Validated in serving on VR200
(GSM8K and sa-bench in the vLLM PR) and in an earlier 120-config comparison against fp64.
run_fused_kda_decodepreviously requiredstride(1) == 1, stride(2) == 3*H*128. It now alsoaccepts
(3, 1)(DS). Any other stride still raises.of 4). Both layouts move conv state as 8-byte vectors; a misaligned slot previously faulted at launch and now
raises
ValueError. All existing tests and benchmarks use aligned pages.backend="auto"fallback to CuTe DSL; with
backend="cake"they raise the existing "does not have a route" error.packed_fused_kda_decode. T=1 runs the same CuTe DSL kernel, so it inherits DS; that combination has nodedicated test. T>1 (multitoken kernel) gains 16/64 heads only and still requires SD; the docstring says so.
tests/trace/fi_trace_out/packed_fused_kda_decode_t3_h12_d128.jsonwas updated by hand(constraints are copied verbatim from the template); regenerating it needs an SM10x GPU.
fused_kda_decoderoutine toflashinfer_benchmark.pyif you want the numbers reproducible in-tree.tests/kdawas run before the vectorized-DS, trace-template and docstring commits. After thevectorized-DS change, the decode test files were rerun on VR200, GB200 and GB300; the trace tests and the dispatch
tests were rerun locally after the last two commits (see Tests). No B200 or Hopper runs.
